Navigating the Digital World as Humans Do: Universal Visual Grounding for GUI Agents
Paper · 2024 · Boyu Gou, Ruohan Wang, Boyuan Zheng et al.
Summary
Most GUI agents rely on HTML or accessibility trees to perceive interfaces and select elements. These text-based inputs are often noisy or incomplete, and they add latency and token cost. The authors argue for agents that work like people: they only see screenshots and act through pixel-level clicks and typing. They propose SeeAct-V, a modular framework built on SeeAct. In it, a general MLLM writes a textual plan, and a separate grounding model converts the plan's element description into screen coordinates.
The main bottleneck is accurate cross-platform grounding. To address it, the team generated synthetic training data from webpages, whose HTML maps cleanly onto rendered boxes. They then trained UGround, a lightly modified LLaVA model that predicts element center points. They evaluated it on six benchmarks covering pure grounding, offline agent tasks and online agent tasks across web, mobile and desktop. UGround beats earlier GUI grounding models by up to 20 points absolute. Screenshot-only agents using it match or beat state-of-the-art agents that also use text-based input. This suggests vision-only GUI agents are practical.
Key points
- Dataset: The released GUI visual grounding dataset is described as the largest so far, spanning roughly 1.3M screenshots that together contain about 10M elements, each paired with a description identifying it, all synthesized from web data.
- Referring expressions: These are grouped into types that capture visual appearance (text, color, element type), position on screen, and what an element does.
- Benchmarks: ScreenSpot (grounding); Multimodal-Mind2Web, AndroidControl and OmniACT (offline agent); Mind2Web-Live and AndroidWorld (online agent), with GPT-4 as the planner.
- Generalization: Although trained only on web data, UGround transfers to mobile and desktop interfaces. It is designed to plug into different planner MLLMs and to handle varied screen resolutions.
- Motivation figures: HTML can take up to roughly 10× more tokens than the matching screenshot. A WebAIM 2024 survey found accessibility errors on 95.9% of top home pages.
