Transforming Science with Large Language Models: A Survey on AI-assisted Scientific Discovery, Experimentation, Content Generation, and Evaluation

Paper · 2025 · Steffen Eger, Yong Cao, Jennifer D'Souza et al.

Summary

The survey looks at how large (multimodal) language models are starting to reshape scientific work. Earlier reviews tended to cover single disciplines or a few tasks. This paper instead follows the research lifecycle from start to finish. It covers five stages: finding and summarizing literature, generating ideas and running experiments, producing text such as titles, abstracts and citations, creating and interpreting figures, tables, slides and posters, and peer review. The authors chose a narrative rather than systematic method, so they pick representative work and compare methods across tasks instead of cataloguing everything. For each stage they discuss datasets, methods, evaluation practice, limitations and ethical risks, and a separate section addresses research integrity.

Their overall assessment is cautious. Current systems help with parts of the workflow, but their abilities are patchy. Many rely on narrow benchmarks and need close human supervision. For now, AI4Science should be treated as a set of supporting tools, not a replacement for human expertise. The survey is useful as an orientation map for newcomers and for teams building AI-for-science pipelines.

Key points

  • Evidence of adoption: About 148,000 papers from 22 non-CS fields show sharply rising citations of LLMs between 2018 and 2024.
  • Example tools covered: Elicit and ORKG ASK (search), The AI Scientist (experimentation), and AutomaTikZ and DeTikZify (figure generation).
  • Assessment by stage:
    • Generated ideas tend to be novel but often infeasible.
    • Automated experimentation is still early-stage and error-prone.
    • Automated reviewing works as an assistant but not as a standalone judge.
  • Truthfulness benchmarks discussed: TruthfulQA, HaluEval, FELM, SelfAware, FreshQA, Pinocchio and TrustLLM. TrustLLM evaluations favour proprietary models, with Llama2 as a notable exception, and show gains when models are given external knowledge.
  • Community resources: New workshops include NSLP, FM4Science, AISD, AI4Research, Agents4Science and SciProdLLM. The authors maintain an updated resource list at github.com/NL2G/TransformingScienceLLMs.
