Rethinking Fine-Tuning when Scaling Test-Time Compute: Limiting Confidence Improves Mathematical Reasoning
Paper · 2025 · Feng Chen, Allan Raventos, Nan Cheng et al.
Summary
Test-time strategies such as pass@N let a model try N times while a verifier checks each attempt. Fine-tuning, however, usually ignores this. The authors ask whether standard supervised fine-tuning with cross-entropy (CE) loss suits such strategies.
They fine-tuned Llama-3-8B-base on MATH and found a new kind of overfitting. With more training epochs, pass@1 kept rising while pass@N for large N actually fell. They trace this to CE making the model overconfident. A model that commits fully to one answer loses the chance to find the right one through repeated sampling. A toy two-problem example shows the same tension between exploiting and exploring.
To fix this, they propose a modified loss, DCO^a, that targets pass@N coverage directly and caps model confidence. It improves results at large N on MATH and MiniF2F. The gains hold for direct answers, Chain-of-Thought traces and proof-tree search in theorem proving.
The broader point is that training objectives and test-time compute budgets should be designed together.
Key points
- Setup: Llama-3-8B-base was fine-tuned on MATH, using 12,000 problems for training and 500 for testing, following the Lightman et al. split. The main findings were also checked on Llama-3-70B-base.
- Overfitting with CE: Pass@N test accuracy for N ≥ 256 drops steadily over training epochs under CE, even though pass@1 improves.
- CoT results at epoch 5 (Table 3): Pass@64 reaches 64.3 with DCO^a (N′ = 64), compared with 60.9 for CE and 35.4 for GRPO. At pass@1, however, GRPO leads with 14.6, ahead of CE at 9.9 and DCO^a at 7.8.
- Overconfidence in GRPO: GRPO also becomes overconfident, and few of its high-confidence answers turn out to be correct.
- Limitations: The method needs a verifier and has been tested only on mathematical reasoning. Extensions to best-of-N, broader RL methods and coding are left for future work.
