Large Language Models as Commonsense Knowledge for Large-Scale Task Planning
Paper · 2023 · Zirui Zhao, Wee Sun Lee and David Hsu
Summary
Household robots given goals like stocking a fridge must plan over huge, partially observable spaces with hundreds of objects and locations. Earlier work asks an LLM directly for the next action (L-Policy), but this generalizes poorly to unusual or compositional tasks. The authors argue that an LLM can also act as a commonsense world model (L-Model), for example by giving a prior belief about where items are likely to be. Their LLM-MCTS algorithm treats planning as a POMDP. It runs Monte Carlo Tree Search, sampling start states from the LLM-derived belief. The LLM's suggested actions only steer the search and are not executed directly. On VirtualHome object-rearrangement tasks, LLM-MCTS beats both plain MCTS and LLM-only policies (GPT2, GPT3.5), with the largest gains on novel, complex tasks. Using multiplication and air-travel planning as case studies, the authors propose minimum description length (MDL) as a rule of thumb: if the world can be described much more compactly than the policy, model-based use of the LLM should be preferred.
Key points
- The benchmark has 800 randomly generated, large-scale, partially observable rearrangement tasks in the VirtualHome simulator. Baselines are MCTS with the LLM world model alone (L-Model) and GPT2/GPT3.5 used as direct policies (L-Policy).
- L-Model on its own performs poorly, and the authors attribute this mainly to the size of the search space rather than an inaccurate world model. L-Policy is reasonable but degrades on novel tasks, while LLM-MCTS outperforms both.
- In the multiplication example, prior results show GPT4 multiplying directly with 100% accuracy for 1 digit, 99% for 2 digits, 4% for 4 digits, and almost none for 5 digits. A single-digit table combined with long multiplication is exact for any size. A full lookup table needs about O(n·10^{2n}) bits, whereas the model-based approach has constant size.
- MDL also explains when L-Policy should win. For a city tourist itinerary, describing the plan itself is shorter than describing every attraction.
- The main limitation is runtime, because the method makes many LLM calls. The authors suggest smaller models such as Llama or distillation as remedies. The paper appeared at NeurIPS 2023, and code is at llm-mcts.github.io.
