The Life Cycle of Knowledge in Big Language Models: A Survey
Paper · 2023 · Boxi Cao, Hongyu Lin, Xianpei Han et al.
Summary
Pre-trained language models (PLMs) such as BERT, T5 or GPT-3 absorb large amounts of knowledge. Research on this knowledge is fragmented, however. Knowledge injection, probing and editing are usually studied separately, so it is unclear how they relate. Cao et al. treat PLMs as knowledge-based systems, drawing on cognitive science and knowledge engineering. They organize the literature around a life cycle with five stages: acquisition, representation, probing, editing and application. For each stage, the authors build a taxonomy of methods, describe the main open problems and suggest future research directions.
The central argument is that the stages inform each other. Understanding how models store knowledge could lead to better pre-training objectives and editing methods. Dependable probing shows where models can be trusted in practice. The survey is useful as a map of the field and points out neglected questions, such as why PLMs pick up knowledge from raw text without explicit supervision. It also asks how that knowledge ends up encoded in their parameters.
Key points
- Acquisition. Knowledge comes from two sources. The first is self-supervised pre-training on plain text. The second is injection of structured data, which the survey groups into entity, factual, commonsense and linguistic knowledge.
- Representation and probing. Representation analysis relies on four families of methods: attention-based, layer-wise, causal-inspired (Meng et al., 2022), and approaches that draw on gradients, as in the work of Geva et al. (2021) and Dai et al. (2022a). Probing is either prompt-based or feature-based:
- Prompt-based probing uses handcrafted, optimized discrete or continuous prompts. It is criticized as inconsistent, inaccurate and unreliable.
- Feature-based probing is either classifier-based or classifier-free.
- Editing. The survey groups editing approaches into constrained fine-tuning, memory-based methods, meta-learning, and locate-and-edit techniques.
- Application. The survey covers LMs-as-knowledge-bases, examined along construction, coverage, interaction and reliability. It also covers downstream use through fine-tuning, prompt learning and in-context learning.
- In-context learning is sensitive to which demonstrations are chosen, their order and their labels.
- Zhao et al. (2021) propose a calibration method to reduce this bias.
- Min et al. (2022) found that randomizing demonstration labels hardly changes performance.
- Resource. A regularly updated paper list is available at github.com/c-box/KnowledgeLifecycle.
