Mix, MinHash, and Match: Cross-Source Agreement for Multilingual Pretraining Datasets
Paper · 2025 · Sultan Alrashed and Francesco Orabona
Summary
Web corpora for languages other than English are crawled again and again by separate groups, so the same pages often appear in several public datasets. For Arabic, the authors found that more than 40% of tokens are shared between sources. They treat this overlap as a quality signal rather than waste. A document kept by several independent pipelines, each with its own filters, has in effect received multiple votes. Their method, MixMinMatch, works in three steps. It pools existing corpora while recording where each document came from. It then runs one joint MinHash near-duplicate pass over the pool. Finally, it keeps clusters that contain documents from at least two sources. The signal costs nothing beyond the deduplication that is normally done anyway. Applied to Arabic, Turkish and Hindi, the method produces AraMix, TurMix and HinMix. Small models pretrained on these corpora match or beat the best single-source corpus, with up to about four times more unique tokens. This shows that the community can reuse existing crawls instead of starting from scratch.
Key points
- Sources: inputs include C4, CulturaX, HPLT 2.0, FinePDFs and FineWeb-2. Arabic also adds ArabicWeb24 and the ClusterLab 101B Arabic Words set. Token counts use the Llama-3.2-3B tokenizer.
- Deduplication settings: character 5-gram shingles, 112 MinHash values split into 14 bands of 8, and a similarity threshold of 0.8.
- Corpus sizes (quality-filtered → deduplicated → matched):
- Arabic: 300.9B → 177.8B → 54.1B tokens
- Turkish: 307.2B → 167.6B → 56.0B tokens
- Hindi: 130.3B → 76.2B → 27.1B tokens
- FineTasks scores:
- AraMix-Matched scores 0.161 against 0.154 for ArabicWeb24 (+4.5%).
- AraMix-MinHash roughly ties the baseline while using 178B tokens instead of 41B.
- TurMix-Matched scores 0.204 against 0.194 for FineWeb-2.
- HinMix-MinHash scores 0.089 against 0.080 for CulturaX (+11.6%).
- The model-free AraMix-Matched also beats the model-scored FineWeb2-HQ.
- Ablation without the strongest source: the authors removed documents unique to the baseline corpus. Matched subsets stayed close to or above the baseline (Turkish 0.203, Hindi 0.087, Arabic 0.152). The plain MinHash mixtures dropped more.
Interesting ideas
- I1. Agreement between independent pipelines is treated as a vote that labels quality for free, much like inter-annotator agreement, with no learned classifier needed.
- I2. Every item carries its source label through all processing, so agreement can be read directly off the clusters that deduplication already builds.
- I3. Each document is released with its agreement count rather than a fixed cut, so users can choose their own strictness threshold later.
- I4. The ablation drops everything that only the strongest source contributed, to check whether gains come from agreement or are merely inherited from the best input.
- I5. Cheap agreement filtering is proposed as a first stage before costly model-based scoring, and the authors suggest weighted voting by source reliability as future work.
For Mova
How these ideas could serve Mova, our small open language model — its files, stages and tests:
- I1 (learn): Silver trees could be kept only where several witness parsers produce the same arcs, and the paper's results support trusting such consensus over any single strong parser.
- I2 (tree): When merging treebanks or converting UD dialects, keep a per-sentence provenance tag so overlaps across treebanks can be found and counted as corroborated.
- I3 (learn): Store how many witnesses agreed on each silver item and treat the minimum agreement as a tunable training knob instead of a hard-coded rule.
- I4 (learn): Use this as a negative control, retraining on silver data with the best witness parser's unique outputs removed to confirm that consensus itself adds value.
- I5 (learn): Filter candidates by parser agreement first and send only the disputed or single-witness cases to the expensive LLM teacher tiers, possibly weighting witnesses by their measured LAS.
