A Survey on Model Compression for Large Language Models
Written for the Research library (claude-opus-5-5) from the paper text. Original — aclanthology.org/2024.tacl-1.85.pdf
Summary
Running LLMs with billions of parameters is costly. A 175B-parameter GPT model, for example, occupies roughly 350GB in FP16 and needs several 80GB A100 GPUs just for inference. This survey, which the authors describe as the first devoted entirely to compressing LLMs, organizes the field into four families: quantization, pruning, knowledge distillation and low-rank factorization. It also separates task-specific techniques (QAT, KD) from task-agnostic ones. For quantization, it contrasts retraining-based QAT with post-training quantization (PTQ), which it splits into weight-only, weight-activation and KV-cache variants. A comparison table reports perplexity loss and speedup for representative methods as published in their original papers. The survey also lists the efficiency metrics and benchmark suites used to judge compressed models. It closes with open problems: the remaining accuracy gap, transferring small-model ideas such as lottery tickets, hardware-aware deployment analysis, scaling-law trade-offs, AutoML-driven compression and explainability. The paper is a practical map for anyone choosing a compression strategy under limited compute.
Key points
- Metrics covered: parameter count, FLOPs, Mean FLOPS Utilization (MFU), inference latency, speedup ratio (original vs. compressed latency) and compression ratio (original vs. compressed size).
- Evaluation resources:
- Perplexity: WikiText-2, C4 and PTB.
- Zero-shot ability: LAMBADA, PIQA and OpenBookQA.
- Reasoning: GSM8K, CommonsenseQA and StrategyQA.
- Broad suites: BIG-Bench (200+ tasks) and the EleutherAI LM Harness (60+ benchmarks).
- Unseen-instruction test sets: Vicuna-Instructions (80 questions in 9 categories) and User-Oriented-Instructions (252 instructions).
- Sample results from Table 1:
- GPTQ on OPT-175B: about 0.34 higher WikiText-2 perplexity, 3.24× speedup.
- AWQ on LLaMA2-70B: 3.2× speedup.
- OneBit: pushes LLaMA-13B weights to 1 bit.
- Suggested direction: pairing QAT with parameter-efficient fine-tuning (e.g., QLoRA, PEQA, LoftQ, L4Q) to cut retraining cost.
