mGTE: Generalized Long-Context Text Representation and Reranking Models for Multilingual Text Retrieval

Summary
Retrieval and RAG systems increasingly need to handle long, multilingual documents. Most multilingual encoders, however, stop at 512 tokens, and LLM-based alternatives are costly to self-host. The authors train a base-sized multilingual encoder from scratch with a native 8192-token window. It uses a BERT-style design with RoPE, gated linear units and unpadding, the XLM-R vocabulary, and data in 75 languages. Masked language modeling proceeds in two phases: first at 2048 tokens, then at 8192. On top of this encoder they build two models through contrastive learning. One is a hybrid text representation model (TRM) that outputs Matryoshka-style elastic dense vectors and sparse term weights. The other is a cross-encoder reranker. The encoder beats XLM-R-base on XTREME-R and GLUE. The TRM and reranker roughly equal the larger BGE-M3 models on standard benchmarks and outperform them on long-context sets such as MLDR and LoCo. They are also considerably faster. The result is a compact, efficient option for multilingual long-document search. That makes it relevant to Ukrainian-language retrieval.
Key points
- The encoders (mGTE-MLM-2048/8192, ~305M parameters) were pretrained on C4, Skypile, mC4, CulturaX, Wikipedia and books. Pretraining used 30% masking and language sampling with α = 0.5, which gives low-resource languages more weight.
- The RoPE base rises from 10,000 at the 2048-token stage to 160,000 at 8192. During contrastive pretraining (mGTE-CPT: 240k steps, batch 16,384, 1k-token inputs), the base is scaled back down to 20,000 ("revNTK"). This made 8k-context retrieval more stable.
- The TRM's fine-tuning loss combines InfoNCE over Matryoshka sub-dimensions (multiples of 32) with a ReLU-based sparse term-weight objective.
- The 304M mGTE-reranker outperforms the 568M bge-reranker-v2-m3 and clearly beats jina-reranker-v2-multilingual. Evaluation covered MIRACL, MLDR, MKQA and BEIR.
- In dense encoding, the TRM runs up to 14× faster than BGE-M3 (52s vs 744s on MLDR-hi using one A100). Unpadding with xFormers alone yields about a 5× speedup. The models are published at hf.co/Alibaba-NLP/gte-multilingual-base.
