Text Embeddings by Weakly-Supervised Contrastive Pre-training

Summary
Single-vector text embeddings are central to retrieval, clustering and classification. However, earlier unsupervised approaches trained on synthetic pairs, such as ICT or random cropping, could not beat BM25 without labeled fine-tuning. The authors present E5, a family of general-purpose embedding models trained contrastively on CCPairs, a new web-scale collection of naturally occurring text pairs. CCPairs draws on Reddit, Stackexchange, English Wikipedia, scientific papers, Common Crawl and news. It is cleaned with heuristics and then with a consistency-based filter, which keeps only pairs that a model trained on the noisy data itself ranks highly. Training uses a shared bi-encoder with "query:"/"passage:" prefixes, average pooling and in-batch negatives with very large batches. An optional second stage fine-tunes on NLI, MS-MARCO and NQ. Without any labeled data, E5 is the first model to outperform BM25 on the BEIR zero-shot benchmark. After fine-tuning, it leads MTEB, where E5 base rivals GTR xxl and Sentence-T5 xxl despite having about 40× fewer parameters. This shows that carefully curated weak supervision can rival much larger supervised embedders.
Key points
- CCPairs construction: About 1.3B mined pairs were reduced to roughly 270M. The filter kept a pair only if its passage ranked in the top 2 against a pool of 1M random passages.
- Effect of filtering: With 1M training pairs, filtered data raised the average score on 6 BEIR datasets from 34.9 to 40.7. On the full data, the filtered set beat the unfiltered one (51.6 vs 50.0) even though the unfiltered set was about 4× larger.
- Batch size and negatives: Growing the batch from 1K to 32K improved the average from 45.8 to 51.6. Plain in-batch negatives outperformed both pre-batch negatives and MoCo.
- Fine-tuning data: Combining NLI, MS-MARCO and NQ gave the best MTEB average (60.4, compared with 55.6 without fine-tuning). MS-MARCO+NQ helped retrieval most, while NLI helped STS and classification.
- Zero-shot classification and setup: On the SST-2 dev set, E5 large reached 85.3 zero-shot, against a majority baseline of 50.9. Evaluation covered 56 datasets from BEIR and MTEB, and the similarity temperature τ was 0.01.
