Summary
Fine-tuning one pre-trained checkpoint for many tasks produces many single-purpose models. Model merging combines them into one multitask model without extra training, but earlier approaches such as weight averaging, Task Arithmetic, Fisher Merging and RegMean lose accuracy as more models are combined. The authors trace this loss to two kinds of interference between task vectors, which are the differences between fine-tuned and pre-trained weights:
- Redundant parameters: small, unimportant updates in some models dilute important updates from others.
- Sign conflicts: models push the same parameter in opposite directions, so averaging cancels the changes out.
Their method, TIES-Merging, works in three steps:
- Trim: keep only the largest-magnitude updates in each task vector.
- Elect sign: choose one sign per parameter, based on which direction has the greater total movement.
- Disjoint merge: average only the values that agree with the elected sign.
The method was tested on language and vision tasks, full and parameter-efficient fine-tuning, and in-domain and out-of-domain evaluation. It beat all compared merging methods across these settings. The analysis also shows that getting parameter signs right largely determines how close a merged model comes to true multitask training. This matters for anyone who wants to reuse existing checkpoints cheaply.
Key points
- Models and setups: experiments use T5-base, T5-large, ViT-B/32, ViT-L/14 and (IA)³ adapters on T0-3B. Retaining only the top 20% of task-vector values by magnitude causes no performance loss.
- In-domain gains: TIES-Merging beats the strongest baseline by 2.3 points (NLP) and 1.7 points (vision) on average.
- Out-of-domain gains: the margin is 1.0 point for T5-base and 4.4 points for T5-large.
- Ablation: removing the scaling step or the disjoint mean hurts most. The drops are 2.5 and 1.9 points for T5-base, and 5.2 and 3.2 points for (IA)³.
- Oracle sign test: using the sign vector of a jointly trained multitask (IA)³ model, merging reaches 72%, versus 73.1% for the multitask model itself. The paper was published at NeurIPS 2023, and code is at github.com/prateeky2806/ties-merging.
