基于大模型的具身智能系统综述

Summary

This survey examines how large pretrained foundation models (LLMs, vision-language models, and vision foundation models such as CLIP, SAM, and DINO) are being integrated into embodied AI, meaning robots that physically interact with their environment. Traditional robot learning is limited by scarce, task-specific data and weak generalization. The authors, from Sun Yat-sen University and Tsinghua University, argue that foundation models can act as a general-purpose "brain" that brings world knowledge and zero-shot ability to robots.

The review is organized around four themes:

  • Perception and understanding: multimodal understanding, 3D scene modelling with NeRF and 3D Gaussian splatting, affordance and constraint extraction, and human feedback.
  • Control hierarchy: a taxonomy of the levels at which large models intervene, namely demand, task, planning, and action.
  • System architectures: end-to-end Transformer policies compared with pipelines built on frozen models.
  • Data sources: simulators, imitation learning from teleoperation, and learning from internet video.

The survey adds recent work that earlier reviews missed. It closes with three open problems: scarce real-world data, slow inference, and coordination among multiple embodied agents. This makes it a useful map for anyone starting research on LLM-driven robotics.

Key points

  • Taxonomy: the four control levels are demand (e.g., SayCan, PaLM-E, Voyager), task (e.g., CaP, VIMA), planning (e.g., VoxPoser, ReKep), and action (e.g., RT-1, RT-2, RT-X, Gato).
  • Reported results: LangSplat answers 3D language queries about 199 times faster than LERF at 1440×1080 resolution. Robo-ABC improves affordance retrieval accuracy by 31.6% and reaches 85.7% success in cross-category grasping.
  • Data resources:
    • BEHAVIOR-1K covers 1,000 everyday activities across 50 scene types, with more than 9,000 objects, simulated in OMNIGIBSON.
    • "Scaling up and distilling down" contributes an 18-task benchmark and reports an average absolute success gain of 33.2%.
  • Imitation-learning hardware: ALOHA, UMI (which uses a 155° fisheye camera on a handheld gripper), HumanPlus, and GELLO.
  • Future directions: the authors suggest combining large-model high-level planning with small-model low-level control, applying pruning and quantization to speed up inference, and scaling multi-robot data collection. As an example of the last, AutoRT directed more than 20 robots and gathered about 77k real-world episodes.
