Recent Advances in Natural Language Processing via Large Pre-Trained Language Models: A Survey
Written for the Research library (claude-opus-5-5) from the paper text. Original — arxiv.org/pdf/2111.01243
Summary
Large Transformer-based pre-trained language models (PLMs) such as BERT and the GPT family have reshaped NLP. Instead of building a separate model for each task from scratch, researchers now reuse one model that learned general representations from huge amounts of unlabeled text. This survey comes from researchers at Raytheon BBN, Harvard, UPenn, Oregon and UPV/EHU. It focuses on non-generative tasks such as classification, sequence labeling, parsing, IE, QA, entailment and sentiment, and sorts recent work into three paradigms:
- Pre-train then fine-tune: adapt a general model to the target task.
- Prompt-based learning: recast a task to resemble the pre-training objective, or a proxy such as entailment, which often enables few-shot learning.
- Text generation: reformulate tasks as generation with models like GPT-2 and T5.
A complementary fourth line covers using PLMs to produce silver-labeled or auxiliary training data. The authors trace the history from Collobert and Weston through ELMo and ULMFiT to the Transformer and compare the main architectures. They end with open problems. The survey works as a structured entry point to this shift, including multilingual models relevant to lower-resource languages.
Key points
- Three PLM classes are distinguished: autoregressive (GPT), masked (BERT) and encoder-decoder (BART, T5).
- Table 1 shows how quickly scale has grown:
- BERT-base: 110M parameters, trained on 3.3B tokens (13GB).
- GPT-3: 175B parameters, about 500B tokens.
- XLM-R (large): 550M parameters, 295B tokens.
- mT5 (XXL): 13B parameters, 6.3T tokens.
- Fine-tuned GPT raised the CoLA score to 45.4, up from a previous best of 35.0.
- Webson and Pavlick (2021) found that irrelevant prompt templates perform about as well as meaningful ones in few-shot entailment. This suggests PLMs may not actually rely on instruction semantics.
- Several questions remain open:
- Whether explicit syntax or semantics (e.g., SRL, the DM formalism) helps PLMs.
- Why these paradigms work.
- How well prompting and generation transfer across languages.
