BRIO: Bringing Order to Abstractive Summarization

Summary
Abstractive summarizers trained with maximum likelihood estimation (MLE) learn to put all probability on the single reference summary. They are never taught how to rank the imperfect outputs they actually produce during beam search. A pilot test on CNN/DailyMail showed that pre-trained BART prefers the better of two of its own candidates only slightly more often than chance. BRIO replaces this one-point target with a distribution in which system-generated candidates also receive probability, ordered by their ROUGE quality. Candidates are produced with diverse beam search. The model is then fine-tuned with a pairwise margin-based ranking loss on length-normalized log-probabilities, combined with the usual token-level cross-entropy so it can still generate text. The resulting model can act both as a generator and as a reference-free scorer of candidates. BRIO set new state-of-the-art ROUGE results on CNN/DailyMail and XSum, and its probabilities track summary quality much more closely. The work suggests that sequence-level ranking objectives can reduce exposure bias in Seq2Seq generation.
Key points
- Reported ROUGE-1: 47.78 on CNN/DailyMail and 49.07 on XSum, both new SOTA at publication. Code and models are released at github.com/yixinL7/BRIO.
- Ranking accuracy, meaning how often the model gives higher probability to the better of the best and worst candidates on CNNDM, rose from 54.80% for BART to 79.63% for BRIO.
- Training objective: cross-entropy plus a weighted (γ) contrastive ranking loss. Its margin grows with the rank gap between candidates, and the variant using both losses is called BRIO-Mul.
- Few-shot setting (BRIO-Few), with 100 CNNDM and 1000 XSum training examples:
- CNNDM ROUGE-1 rose from 44.29 to 45.81 over BART.
- XSum ROUGE-1 rose from 47.46 to 47.95 over PEGASUS.
- Noise filtering: BART reproduced the "click here" hyperlink artifact in 96 test summaries, while BRIO-Mul never generated it.
