Summary
Long-context LLMs are usually judged by perplexity, synthetic probes such as passkey retrieval or needle-in-a-haystack, or long-document QA and summarization. A model can pass these tests by locating one relevant snippet, without grasping the whole input. The authors introduce LongICLBench, which uses in-context learning on extreme-label classification instead. To answer correctly, a model must take in demonstrations covering a very large label space spread across the entire prompt. The benchmark combines six datasets with 28 to 174 classes. Prompts contain 1 to 5 examples per label, giving inputs of roughly 1K–50K tokens. Fifteen open-source and commercial long-context models were evaluated. They handle small label sets and short prompts reasonably well, but accuracy drops sharply as tasks get harder. On Discovery, almost every model scores near zero. Further analysis shows a preference for labels placed late in the prompt and losses when same-class examples are clustered. The study suggests that advertised context windows overstate real long-input reasoning, and it offers a more realistic test.
Key points
- Datasets: GoEmotion, BANKING77, TacRED, Few-NERD, DialogRE and Discovery, covering emotion, intent, relation, entity and discourse-marker classification.
- On Discovery (174 labels, 10K–50K tokens), Gemini-1.5-Pro reaches only 14% accuracy, while a fine-tuned BERT achieves about 87%.
- Non-Transformer models (RWKV-5-World, Mamba-2.8B) score near zero on most tasks, far behind Transformer-based models.
- Adding demonstrations helps only up to a certain length; beyond it, performance stagnates, fluctuates or declines.
- Grouping same-class examples together cuts accuracy by 20.3% for GPT4-turbo and 22.3% for Gemini-1.5-Pro, while ChatGLM3-6B-32K loses only 3.3%.
