Probing Contextual Language Models for Common Ground with Visual Representations
Summary
The paper asks how far text-only contextual language models encode information that lines up with visual representations of concrete nouns, without any visual supervision during pre-training. The authors take image captioning data (mainly MS-COCO, plus Flickr30k), match nouns in captions to objects found by a frozen object detector, and pair each word's contextual embedding with the detector's features for that object. A small probe, trained with a contrastive loss, maps language vectors into the visual feature space. It is then tested on object categories it never saw in training: it must rank the correct image patch above mismatched ones. A control task with deliberately shuffled pairs checks that the probe is selective. Text-only models (BERT, RoBERTa, ALBERT, T5) find patches of the correct category with high recall and also identify specific instances much better than GloVe. Context drives this advantage. Visually grounded models are only slightly better, and humans clearly outperform all models. The work offers a way to inspect existing models for visual knowledge without modifying them.
Key points
- For unseen categories, the category-level recall of all text-only models falls between 84% and 90%. BERT base retrieves the exact paired instance within its top 5 about 36% of the time, well above non-contextual GloVe.
- When caption tokens are progressively masked, BERT's instance retrieval drops sharply. With only the object tokens left, BERT does marginally worse than GloVe. Nouns modified by adjectives (identified with the AllenNLP dependency parser) are retrieved more accurately.
- Using only their language branches, the grounded models LXMERT, VL-BERT (base and large) and VILBERT-MT edge out BERT base. VILBERT-MT scores best, with IR@1 of 15.4 versus 12.0 and IR@5 of 42.4 versus 36.0.
- In a human study, 17 annotators produced over 1000 judgments on 100 test samples, choosing among 100 patches each. IR@1 was 76% for humans, 53% for VILBERT-MT, 43% for BERT base, and 1% for chance.
- Results with BERT base stay consistent between MS-COCO and the much smaller Flickr30k.
