Analysis Methods in Neural Language Processing: A Survey

Summary
Neural end-to-end models have replaced many feature-engineered NLP systems. Their inner workings are much harder to inspect than hand-crafted features. Belinkov and Glass survey the fast-growing research that tries to open up these models. They sort it into six themes: which linguistic information network representations encode, visualization, challenge sets (test suites) for fine-grained evaluation, adversarial examples, explanations of individual predictions, and other techniques such as erasure experiments and tests of which formal languages a network can learn. They also show that this work has roots in early connectionist research, such as Elman's RNN analyses. The paper runs no new experiments. Its contribution is a taxonomy plus an online catalogue of the studies it covers. The authors conclude that networks capture a lot of linguistic structure, especially frequent phenomena. However, analysis methods lack theoretical grounding and rigorous evaluation, and most of the work targets English. For Ukrainian NLP work, the survey offers a practical map of diagnostic tools and an explicit call for resources in other languages.
Key points
- The most common method trains a model (e.g., for MT), freezes it, and fits a separate classifier on its hidden states to predict properties such as POS tags. These classifiers go by several names: auxiliary prediction tasks, diagnostic classifiers, or probing tasks.
- Example: Shi et al. (2016b) applied logistic regression to the encoders of English→French and English→German NMT models. Both word-level and sentence-level syntax could be recovered, with local features in lower layers and more abstract information in higher ones. Linzen et al. (2016) found that LSTM language models handle common subject–verb agreement cases but need direct supervision for harder ones.
- Supplementary tables SM1–SM3 list detailed references for the sections on linguistic information, challenge sets and adversarial examples. They are hosted at boknilev.github.io/nlp-analysis-methods.
- Text is discrete, so adversarial attacks are hard to keep imperceptible to humans. Studies limit the number of edit operations, filter replacements by word or sentence similarity, or use synonym lists.
- Gaps the authors identify: little work on explaining predictions, mostly qualitative evaluation (especially of visualizations), challenge sets limited mainly to NLI and MT, and a strong English bias (MT is the exception).
