More Than Efficiency: Embedding Compression Improves Domain Adaptation in Dense Retrieval
Paper · 2026 · Chunsheng Zuo and Daniel Khashabi
Summary
Dense retrievers trained on broad, general-purpose text often lose accuracy in specialized fields such as biomedicine or finance. The usual remedy is fine-tuning on annotated query-document pairs, which is expensive and often impractical. Zuo and Khashabi argue that PCA, normally used only to shrink embeddings for faster search, can also serve as a cheap adaptation step. Their method fits PCA on unlabeled embeddings from the target domain. It then projects both queries and documents into the reduced space and ranks documents by cosine similarity there, without changing the encoder's weights. The authors compare two fitting variants: queries only, and queries plus documents. Across 9 retrievers and 14 MTEB datasets, the query-only variant raises NDCG@10 for most model-dataset pairs and beats the combined variant. The work matters because it gives practitioners a nearly free first step before investing in synthetic data generation, pseudo-labeling, or fine-tuning. It is especially useful when labeled in-domain data is scarce.
Key points
- Fitting PCA solely on query embeddings improves NDCG@10 in 75.4% of the 9-model × 14-dataset combinations. The authors present query-only fitting as more effective than fitting on queries plus documents.
- Moderate compression, keeping roughly 50–90% of components, frequently helps. The best retention ratio depends on the model and dataset, and r = 0.9 is suggested as a conservative default.
- The authors measured each model's familiarity with a domain through embedding stability under paraphrases. Its link to PCA gains varies by model:
- Instructor and BGE show strong, significant positive correlations.
- Distilled Roberta shows a moderate, significant positive correlation.
- Sent-T5, MiniLM and MP-All show weak or negligible trends that are not significant.
- On a Tas-B encoder, PCA was compared with IDA (Thakur et al., 2023), a GPL-based method:
- PCA roughly equals GPL on SciDocs (12.1% vs 13.4%) and FiQA (14.3% vs 14.6%).
- Across every one of the five datasets the two studies share, PCA scores higher than both the GPL + BPR and GPL + JPQ combinations.
- Limitations:
- Gains are bounded by what the pretrained encoder already knows.
- The method needs enough unlabeled queries for stable covariance estimates.
- Retention ratios must be tuned empirically.
