RAG over Tables: Hierarchical Memory Index, Multi-Stage Retrieval, and Benchmarking

Paper · 2026 · Jiaru Zou, Dongqi Fu, Sirui Chen et al.

Summary

Many real questions can only be answered by combining facts spread over several tables, yet RAG systems mostly target plain text, and realistic benchmarks for multi-table retrieval are scarce. The authors propose T-RAG, a retrieval framework built for large table collections. Each table is linearized from its caption and headers and described by three feature views: semantic embeddings, spaCy-based structural statistics, and TF-IDF. KMeans clustering is run separately on each view, and the resulting clusters serve as different kinds of hyperedges in a heterogeneous hypergraph. At query time, a coarse stage keeps only representative tables from each cluster. A fine stage then scores a subgraph with PageRank-style ranking, and the selected tables are passed to the LLM in a graph-aware arrangement. The authors also release MultiTableQA, a benchmark assembled from real-world sources. T-RAG outperforms table retrieval, RAG, and table-to-graph baselines on accuracy and recall while keeping latency competitive. It also improves answer quality across several backbone LLMs, which makes it a practical option for QA over databases or web tables.

Key points

  • MultiTableQA has 57,193 tables and 23,758 questions across three tasks: table fact verification (TFV), single-hop TQA, and multi-hop TQA.
  • Retrieval gains reach up to 9.4% over prior methods. Downstream QA improves by about 11.8% on average across LLMs such as Qwen-2.5, Claude-3.5, and GPT-4o (the abstract's figure); the main text reports 11.2% against the strongest baselines.
  • The coarse stage removes about 87–88% of candidate tables, and the fine stage reduces the pool to the final 10 (e.g., 34,351 → 4,204 → 10 for TFV).
  • On Spider with GPT-4o, T-RAG scores 31.9 Accuracy@10, 42.3 Recall@10, and 73.9 EM@10, beating TAPAS (25.4 / 38.6 / 71.1), Table-E5, and DTR.
  • Code and data are available at github.com/jiaruzouu/T-RAG. The authors name GNNs such as GAT and LLM fine-tuning as future directions.
