Balancing Fidelity and Plasticity: Aligning Mixed-Precision Fine-Tuning with Linguistic Hierarchies
Paper · 2026 · Changhai Zhou, Shiyang Zhang, Yuhua Zhou et al.
Summary
Fine-tuning large language models on memory-limited hardware usually combines weight quantization with LoRA adapters. Existing methods set these two choices separately. This paper argues that they are linked: an adapter can only adapt as well as the frozen weights beneath it allow. If a layer's weights are badly degraded by low precision, giving it a larger adapter rank helps little. The authors call this the Fidelity-Plasticity Trade-off.
They propose QR-Adaptor, which chooses the bit-width and the LoRA rank for each layer together. The choice is framed as a multi-objective discrete search, run in three stages:
- KL-based sensitivity profiling, which supplies the starting configurations;
- a Pareto-ranking genetic algorithm, which explores the search space broadly;
- Bayesian optimization, which refines the best candidates locally.
Experiments cover LLaMA and Qwen models, including instruction tuning on OpenOrca and comparisons with QDoRA. Under a 4-bit memory budget, QR-Adaptor matches or comes close to 16-bit LoRA baselines while using much less memory. The search consistently gives deeper layers more precision and rank. This matters because it shows that where memory is spent across layers affects quality, not only how much memory is used in total.
Key points
- Motivating test (Qwen3-1.7B): four configurations were compared. One kept shallow layers at 2-bit and deep layers at 4-bit; another did the reverse with the same memory budget. The deep-high-precision version clearly performed better on MMLU and WikiText-2 perplexity.
- Configuration found for LLaMA-3-8B: shallow layers (about 0–10) received low bit-widths and small ranks. Later layers (about 20–32) received more of both. The authors are cautious about the cause. They link this pattern to probing studies of layer specialization, but also to quantization error building up with depth.
- Validation of the profiling stage: the final bit-widths correlate strongly with the Phase I sensitivity scores (Pearson r > 0.8). The validation perplexity during search was measured on C4.
- Ablation (LLaMA-3-8B): the full method reached about 69.5% average accuracy. Each of the following variants scored lower, at roughly 67.5–68.2%:
- fixing the rank at r=16;
- fixing all weights at 4-bit;
- replacing Phase I with random initialization.
- Limitations and code: the search costs roughly 0.5 training epochs. Actual wall-clock speedups depend on mixed-precision kernel support. Code is released at github.com/harrysyz99/qr_adapter.
