Solving Formal Math Problems by Decomposition and Iterative Reflection
Paper · 2025 · Yichi Zhou, Jianqiu Zhao, Yongxin Zhang et al.
Summary
Off-the-shelf large language models reason well about mathematics in natural language but struggle to write formal Lean 4 proofs. Lean code is scarce in training data, and fine-tuning specialized provers requires costly expert annotation and heavy compute. The authors propose Delta Prover, an agent from ByteDance Seed that couples an unmodified general-purpose model (Gemini 2.5 Pro 05-06) with the Lean 4 environment and requires no additional training.
The agent combines two mechanisms:
- Iterative proof repair. The model revises failed proofs using compiler error messages, supplemented by retrieved lemmas and tactics.
- Reflective decomposition. The model drafts a proof sketch in a custom DSL layered on Lean 4. The sketch is split into subgoals that are proved separately and then automatically reassembled. When a subgoal cannot be proved, the plan is revised.
On miniF2F-test, Delta Prover solves 95.9% of problems, beating fine-tuned provers. Ablations show that repair scales better with compute than independent sampling. The work suggests that agent orchestration can substitute for model specialization in formal reasoning.
Key points
- Benchmark results: 95.9% on miniF2F-test and 85% on its IMO subset. The strongest training-required systems score lower: Kimina-Prover 72B reaches 92.2% and DeepSeek-Prover-V2 671B reaches 88.9%. Plain Best-of-N sampling with the same Gemini 2.5 Pro 05-06 model reaches only 49.1%.
- Budget allocation: With a fixed budget of 1024 attempts, spending more of it on repair steps within a single trajectory beat spending it on more fresh restarts. Iterative repair outperformed Best-of-N, and the gap widened as compute grew.
- IMO 2019 Problem 1: Previously unsolved by DeepSeek-Prover-V2, the problem was split into 83 subproblems and solved in about 332 API calls. Repair alone failed even after 1024 calls.
- Data scarcity motivation: LEAN-GitHub, the largest Lean 4 corpus, holds only about 0.13B tokens, roughly 0.1% of a typical code corpus.
- Availability and future work: Code is published at github.com/ByteDance-Seed/lean4-agent. Planned extensions include evolutionary search (in the style of FunSearch and AlphaEvolve) and reinforcement learning on top of the agent workflow.
