From Isolated Scoring to Collaborative Ranking: A Comparison-Native Framework for LLM-Based Paper Evaluation
Paper · 2026 · Pujun Zheng, Jiacheng Yao, Jinquan Zheng et al.
Summary
LLM-based paper assessment usually gives each manuscript an absolute score on its own. Because rating scales differ between venues, years and review criteria, models trained this way tend to learn venue-specific conventions rather than general judgment of quality. The authors propose CNPE, a framework that treats evaluation as a ranking problem built from pairwise comparisons at every stage. For data, a graph-based algorithm (GBR-BR) combines embedding retrieval with reranking to select informative pairs of papers from related and neighbouring research areas. For training, a Qwen2.5-7B-Instruct model first receives supervised fine-tuning on pairs labelled with quality preferences. It is then refined with reinforcement learning, using rewards that check whether its comparison is correct. At inference, the model's pairwise verdicts are merged into one ranking with the Bradley-Terry model. On ICLR-2025, the 7B system beats the larger DeepReview-14B on ranking and acceptance prediction. It also transfers to venues it was not trained on. This indicates that comparative judgment generalizes better than learning a fixed scoring scale.
Key points
- CNPE reports an average relative gain of 21.8% over DeepReview-14B on the ICLR-2025 data, with leading results on all ranking and acceptance-prediction metrics.
- The model generalizes to five unseen 2025 submission sets: ICML, NeurIPS, ACL, EMNLP and NAACL. Accepted papers receive higher scores than rejected ones by +18.5 for ICML and +15.9 for NeurIPS. Gaps between Findings and Long Papers are +5.2 for ACL, +11.4 for EMNLP and +8.9 for NAACL.
- In ablations, both SFT and RL contribute to performance. Combining similarity-based sampling with random sampling works better than using either one alone.
- The untrained base model strongly favours the paper shown first. After SFT and RL, rankings no longer correlate significantly with input position.
- Limitations: the model sees only titles and abstracts, the data covers only computer science conferences from 2025, and performance remains below human reviewers. The code is open-sourced.
