CycleResearcher: Improving Automated Research via Automated Review
Paper · 2024 · Yixuan Weng, Minjun Zhu, Guangsheng Bao et al.
Summary
The paper asks whether open-source LLMs, after post-training, can carry out the whole research loop: reading literature, forming ideas, designing experiments, writing, getting reviewed, and revising. Earlier "AI scientist" systems mostly relied on commercial APIs, so they could not be optimized with reinforcement learning. The authors pair two trainable models. CycleResearcher is a policy model that drafts outlines and full papers. CycleReviewer is a reward model that imitates peer reviewers. The reviewer's scores turn batches of generated papers into win/lose preference pairs, and these pairs update the researcher through repeated SimPO rounds. Training uses two new corpora built from ML conference material: Review-5k (papers with reviews) and Research-14k (accepted papers with structured outlines). CycleReviewer predicts paper scores more accurately than a single human reviewer does. Generated papers score slightly above human preprints in simulated review but below accepted papers. The work matters as an open, RL-trainable baseline for automated research and review. However, the experimental results in generated papers are fabricated, and the authors explicitly warn against using LLMs to write papers.
Key points
- Models range from 12B to 123B parameters and are built on Mistral and Qwen 2.5. Actual experiment execution is handed off to code models, and results in the RL environment are fabricated to speed up training.
- Review-5k contains 4,991 ICLR 2024 papers with more than 16,000 reviewer comments, split 4,189 for training and 782 for testing. Paper texts come from arXiv LaTeX or from PDFs converted to Markdown with MagicDoc.
- Research-14k pairs the main text of accepted papers from venues such as ICLR, ICML and NeurIPS with structured outlines covering motivation, method, setup and results.
- CycleReviewer reduces MAE in score prediction by 26.89% compared with individual human reviewers.
- CycleResearcher papers average 5.36 in simulated review, against 5.24 for human preprints and 5.69 for accepted papers, with a simulated acceptance rate of 31.07%. Code, data and weights are released at wengsyx.github.io/Researcher.
