Hierarchical Reinforcement Learning with Augmented Step-Level Transitions for LLM Agents
Paper · 2026 · Shuai Zhen, Yanhua Yu, Ruopei Guo et al.
Summary
LLM agents that solve multi-step interactive tasks usually feed the model the entire, ever-growing record of past observations and actions. This makes inference costly, since attention cost rises quadratically with context length, and it buries decision-relevant signals under redundant text. Existing hierarchical RL agents still depend on this accumulated history. The authors propose STEP-HRL, which replaces raw history with compact progress representations. At the global level, the list of already completed subtasks stands in for overall task progress. At the local level, a dedicated local progress policy rewrites a short textual summary after every step inside a subtask. The high-level policy, which proposes subtasks, and the low-level policy, which selects primitive actions, therefore operate on fixed-size, single-step transitions. All three policies share one LLM backbone, and each has its own critic. Training begins with behavior cloning on expert demonstrations and continues with step-level offline RL. On ScienceWorld and ALFWorld, STEP-HRL outperforms baselines in performance and generalization while using fewer tokens. This suggests that strong agents do not need long-context conditioning.
Key points
- Evaluated on ScienceWorld and ALFWorld. STEP-HRL beats baselines, generalizes better and reduces token usage; according to the authors, the behavior cloning stage alone already surpasses existing baselines.
- Design: high-level, low-level and local progress policies share parameters but use separate value networks. The low-level policy sees only the current subtask, the current observation and the local progress summary. An intrinsic reward of 1 is given when a step completes the subtask.
- Offline RL data: mixing expert demonstrations with trajectories collected by the BC policy works better than either source alone. Using twice the expert data volume gave the best results, and larger datasets brought diminishing returns.
- Limitations: the method needs high-quality expert data with carefully designed subtasks and progress annotations. Subtask termination is predicted together with actions, which can cause premature or delayed termination.
