Unleashing Low-Bit Inference on Ascend NPUs: A Comprehensive Evaluation of HiFloat Formats
Paper · 2026 · Pengxiang Zhao, Hui-Ling Zhen, Xing Li et al.
Summary
The paper asks whether Huawei's HiFloat number formats, built for Ascend NPUs, work well for post-training quantization (PTQ) of large language models. HiFloat had previously been studied mainly for training. The authors compare HiF8 and HiF4 against INT, MXFP, and NVFP4 for weights, activations, and KV cache. They measure layer-wise SQNR, plot value distributions, and run end-to-end benchmarks on Qwen3-8B and openPangu-7B. They also pair the formats with the RTN, SmoothQuant, and SVDQuant pipelines. At 8 bits, INT8 is the strongest choice for tightly bounded tensors such as weights. Floating-point formats are better for activations, which are volatile and contain outliers. At 4 bits, integer formats break down. HiF4's three-tier scaling instead keeps accuracy close to BF16, and it remains the most robust option even when the KV cache is also quantized. On real Ascend hardware, HiF8 runs faster than BF16. For Ascend deployments, this offers practical guidance on choosing low-bit formats.
Key points
- HiF4 structure: A 64-element block shares an E6M2 scale. That scale is refined by 1-bit factors at the 8-element and 4-element levels. Elements are stored as E1M2, for about 4.5 bits per element.
- Why INT8 wins on weights: Within [−1, 1], INT8 provides 256 representable levels. By comparison, E4M3 offers 113, HiF8,101, and E5M2 89. A per-channel scaled variant, HiF8 (scaled), reaches fidelity similar to MXFP8.
- HiF4 at W4A4 with plain RTN: It retains over 96.5% of BF16 performance on Qwen3-8B and 97.0% on openPangu-7B. SmoothQuant or SVDQuant improve these results further.
- KV-cache stress test: With 4-bit KV quantization, MXFP4 loses more than 60% on openPangu-7B. HiF4 limits the loss on Qwen3-8B to 3.15% (Q16KV4) and 3.92% (QKV4).
- Speed on Ascend (Qwen3-30B-A3B): HiF8 is 1.17× faster than BF16 in prefill and 1.47× faster in decode. Optimized HiF4 kernels are not finished yet. MXFP4 (1.22× and 2.14×) is used as a lower-bound estimate for HiF4.
