PAPERMIND: Benchmarking Agentic Reasoning and Critique over Scientific Papers in Multimodal LLMs

Paper · 2026 · Yanjun Zhao, Tianxin Wei, Jiaru Zou et al.

Summary

PaperMind is a benchmark for testing whether multimodal LLMs can reason about scientific papers in an integrated, agent-like way. Earlier benchmarks usually measure one skill at a time, such as layout parsing, single-paper QA, summarization, or tool use within one field. PaperMind instead tests several interacting skills on real papers spanning seven fields: economics, physics, medicine, computer science, chemistry, biology, and agriculture.

It has four task families:

  • Multimodal grounding: writing a caption for a figure, given the paper's introduction.
  • Experimental interpretation: explaining reported results.
  • Cross-source evidence reasoning: using tools to find and combine external evidence.
  • Critical assessment: answering reviewer questions taken from real OpenReview discussions.

Open- and closed-source models were scored with F1 and an LLM judge. All of them show steady performance gaps across tasks. Weak multi-step tool interaction and shallow use of retrieved evidence are recurring weaknesses. The benchmark lets researchers diagnose these failures, not just report a single success rate. This makes it useful for building research-assistant agents.

Key points

  • The source pool was 3,000 open-licensed papers from ArXiv, bioRxiv, and Semantic Scholar. Papers shorter than 5 pages or longer than 20 pages were removed, as were badly formatted PDFs.
  • The Critical Assessment task has 294 reviewer–author QA pairs from OpenReview, all in computer science.
  • On Cross-Source Evidence Reasoning, giving the model the external references directly improved Gemini 2.5 Pro by 22.6% on F1 and 25.4% on the LLM-judge score. This shows that retrieval itself is a large part of the difficulty.
  • In the failure analysis of Qwen3-VL-4B-Instruct (eight error categories, annotated by Gemini-2.5-Pro), the most common error was "Insufficient Interaction Steps" at 77%, with about 2.27 interaction steps per question. "Shallow Evidence Integration" and failing to notice flawed reviewer premises also appeared often.
  • The authors note a limitation: evaluation relies entirely on LLM-as-a-Judge, whose agreement with human judgment may vary across question types and domains. The data is available at github.com/Yanjun-Zhao/PaperMind.
