Learning to Extract Rational Evidence via Reinforcement Learning for Retrieval-Augmented Generation
Paper · 2026 · Xinping Zhao, Shouzheng Huang, Yan Zhong et al.
Summary
Retrieval-augmented generation often fails when retrieved passages contain irrelevant or misleading text. Existing denoisers rerank or summarize passages in a single pass and may drop the decisive clue. The authors propose EviOmni, a framework in which an extractor model first writes an explicit rationale about the passages (inside <reason> tags) and then produces condensed evidence (inside <extract> tags). Training uses on-policy reinforcement learning with GRPO. Rule-based verifiable rewards cover answer correctness, evidence length and output format. Knowledge token masking prevents information from leaking when answers are generated from the rationale or from the evidence. A preliminary study supports the idea: evidence produced after reasoning keeps the gold answer more often than evidence extracted directly. Across five benchmarks, EviOmni yields shorter yet more useful context, improves downstream accuracy, generalizes beyond its training data and tolerates retrieval noise. It works with both traditional pipelines and agentic search setups. This matters because cheap, compact, high-recall context is central to practical RAG systems.
Key points
- Pilot study setup: The authors built about 620 filtered examples from 1K NQ training instances, with outputs generated by DeepSeek-R1. They fine-tuned Qwen2.5-1.5B-Instruct with LoRA (rank 16, 3 epochs).
- Answer Recall results:
- On NQ: 70.79% for vanilla evidence, 75.24% for rational evidence and 77.30% for the rationale itself.
- On out-of-distribution HotpotQA: 60.55%, 67.74% and 71.48% respectively.
- Robustness: Even with 8 added irrelevant passages, EviOmni outperforms the FilCo baseline that receives no noise. On an A800 GPU, extraction latency is lower than with FilCo or CoT.
- Released resources: The models are EviOmni-nq_train-1.5B and EviOmni-nq_train-7B (HIT-TMG on Hugging Face). Code is in the HITsz-TMG/EviOmni repository on GitHub.
- Limitation: The rationale must be generated before the evidence, which adds latency. The authors suggest adaptive reasoning, skipping the rationale for simple queries, as future work.
