Tiny Budgets, Big Gains: Parameter Placement Strategy in Parameter Super-Efficient Fine-Tuning

Paper · 2025 · Jinman Zhao, Xueyan Zhang, Jiaru Li et al.

Summary

Parameter-efficient fine-tuning methods such as LoRA lower the cost of adapting large models. Yet models now reach hundreds of billions of parameters, so even rank-1 LoRA can be too heavy for mobile hardware or labs with little compute. The authors ask how a very small, fixed budget of trainable parameters should be distributed. They start from FourierFT, which learns a sparse set of frequency coefficients and turns them into a weight update through an inverse Fourier transform. Controlled reconstruction experiments on random matrices then reveal two patterns. First, a fixed number of sparse coefficients reconstructs small matrices more accurately than large ones. Second, passing the update through a narrow intermediate matrix gives lower error than approximating the full matrix directly. Based on this, they propose FoRA-UA, which runs several small sparse-Fourier matrices in parallel, concatenates them, and pairs them with a shared adaptor. FoRA-UA was tested on NLU, NLG, math instruction tuning and image classification. It matches LoRA and other strong baselines while using only about 1–5% of LoRA's trainable parameters.

Key points

  • On GPT2-medium, FoRA-UA beats RED and FourierFT. It reaches comparable quality with roughly 37% of VeRA's and 9% of LoRA's parameter count. At an equal budget of 0.098M parameters (LoRA's rank-1 size), it wins on all five generation metrics.
  • LLaMA2-7B and LLaMA3-8B were tuned on Math-10K with the LLM-Adaptor framework. FoRA-UA performs on par with LoRA using about 2% of its parameters.
  • On ViT (ImageNet-21K pretrained), FoRA-UA trains 36K parameters on ViT-Base versus 294.9K for LoRA, and 48K on ViT-Large versus 786K. Accuracy on CIFAR100, Food101, Flower102 and RESISC45 stays close to LoRA and full fine-tuning.
  • In ablations on RoBERTa-base, splitting the update into 2–3 submatrices beats a single matrix, with 2 best for CoLA and 3 for MRPC. With 4 splits, performance drops because each piece gets too few parameters.
  • For one module with hidden size 1024, FoRA-UA costs 67.1M FLOPs. This is more than LoRA (16.8M) but far below VeRA (268M). Code is released at github.com/zhaojinm/FoRA-UA.
