The Automated LLM Speedrunning Benchmark: Reproducing NanoGPT Improvements
Paper · 2025 · Bingchen Zhao, Despoina Magka, Minqi Jiang et al.
Summary
The paper asks whether current AI research agents can reproduce known results in LLM training, which is a prerequisite for automating scientific research. The authors build the Automated LLM Speedrunning Benchmark from the community NanoGPT Speedrun, a competition to train a 124M-parameter GPT-2 to a validation cross-entropy of 3.28 on FineWeb as fast as possible on one 8×H100 node. Each task gives the agent the training script of one record and asks it to reach the speed of the next record. Agents may optionally receive hints at three levels of detail, from pseudocode to a short paper-style write-up. Performance is scored by how much of the human speedup the agent recovers. The agents combine reasoning LLMs with AIDE-style search scaffolds. They recover only a modest share of the known improvements, even with detailed hints, and their gains fade further when they must build on their own earlier solutions. The benchmark is therefore far from saturated. It offers a single, comparable metric for tracking reproduction ability on problems relevant to real LLM development.
Key points
- The benchmark has 19 tasks built from consecutive records among the 21 NanoGPT Speedrun records (as of May 2025). One transition is excluded because its gain came only from a PyTorch upgrade. Over this record history, human contributors cut GPT-2 training time from 45 minutes to under 3 minutes, partly through innovations such as the Muon optimizer.
- The hint levels are L1 (pseudocode), L2 (text description) and L3 (mini-paper), and they can be combined. The main metric is FSR (fraction of speedup recovered), averaged across records, and it is complemented by code-similarity scores against the human solutions.
- The evaluated models include o3-mini, DeepSeek-R1, Claude 3.7 Sonnet and Gemini-2.5-Pro, run with AIDE and an extended multi-AIDE scaffold. All of them fall well short of the human record speedups.
- In a cumulative setting, o3-mini with multi-AIDE and all hints starts from the original record and builds on its own code. It recovers about 60% of the speedup for the first transition, about 20% for the next, and none by the third.
- The authors list several limitations: hints are hand-written and short, possible memorization of public records is not ruled out, and the benchmark tests reproduction rather than new discovery. Code is available at github.com/facebookresearch/llm-speedrunner.
