Towards Proactive Personalization through Profile Customization for Individual Users in Dialogues
Paper · 2026 · Xiaotian Zhang, Yuan Wang, Ruizhe Chen et al.
Summary
LLM alignment work mostly targets population-wide values or single-turn preferences. This leaves two gaps: keeping up with a specific user's changing tastes over many conversations, and handling a new user the system knows nothing about (cold start). The authors propose PersonalAgent, a lifelong agent that maintains one evolving profile per user. Instead of reading the full dialogue history at once, it processes the dialogue turn by turn. At each turn it revises the profile using what the user just revealed, so preference inference becomes a multi-turn Markov Decision Process optimized jointly across turns. Training uses reinforcement learning with an LLM judge (Qwen3-30B-A3B) as the reward signal. For cold-start evaluation, the authors build a new dataset, ALOE-Unseen, which tests whether an agent asks users clarifying questions before answering. Across PrefEval, ALOE and ALOE-Unseen, PersonalAgent beats prompt-based and policy-optimization baselines. It also holds up best when unrelated dialogue is inserted after the turns that reveal preferences. This matters for conversational assistants that should adapt to individuals consistently across sessions.
Key points
- Method: Dialogues are split into single turns, and a unified profile (11 dimensions recommended) is refined incrementally and stored across sessions. The reward is policy-based, judged by Qwen3-30B-A3B on criteria such as completeness, absence of hallucination, consistency and informativeness.
- Training paradigm: Under the same turn-wise setup, RL raises average alignment by about 22% over SFT. A judge-based reward also outperforms BLEU- and F1-based rewards.
- Robustness to noise: When irrelevant turns are inserted, PersonalAgent drops only about 6% on PrefEval. Retrieval-based baselines drop about 13% and reasoning-based ones about 20%. All methods degrade more on ALOE, which contains richer preferences.
- Human validation: Four annotators each rated 100 samples. Cohen's Kappa agreement with both the training judge (Qwen3-30B-A3B) and the evaluation judge (GPT-4.1) exceeds 0.77.
- Resources: The code and the ALOE-Unseen cold-start benchmark are publicly released. The paper appears in Findings of ACL 2026, pp. 3221–3240.
