Logit Arithmetic Elicits Long Reasoning Capabilities Without Training
Paper · 2026 · Yunxiang Zhang, Muhammad Khalifa, Lechen Zhang et al.
Summary
Large reasoning models acquire long chain-of-thought behaviours, such as backtracking and self-checking, through costly post-training. This paper asks whether a frozen large model can show these behaviours at inference time instead. The authors propose ThinkLogit, a decoding method based on logit arithmetic. At every step, it takes the logit difference between a small long-reasoning guider and its non-reasoning base model, scales it by a coefficient α, and adds it to the large target's logits.
A variant, ThinkLogit-DPO, further trains only the guider with DPO. It uses mixed preference pairs: the target's correct answers are preferred over the guider's wrong ones, and the guider's correct answers over the target's wrong ones. This teaches the guider to fix target errors without breaking what the target already gets right.
With Qwen2.5-32B guided by R1-Distill-Qwen-1.5B, a model 21× smaller, the methods improve results on six math, science and coding benchmarks. They also transfer across model families. This matters when fine-tuning the large model is impractical, for example with very large, black-box or privacy-constrained models.
Key points
- Evaluation: six benchmarks were used: AIME2024, AIME2025, AMC23, MATH-500 Level 5, GPQA Diamond (198 questions) and a 200-problem subset of LiveCodeBench v5. The metric is Avg@8, with temperature 0.6 and up to 8192 output tokens.
- Gains: relative improvements over the frozen Qwen2.5-32B were 21.5% for ThinkLogit (zero trainable parameters) and 24.2% for ThinkLogit-DPO (78M trainable parameters). Fully fine-tuned s1.1-32B and R1-Distill-Qwen-32B still score higher.
- Cross-family transfer: a single 1.5B Qwen-based guider successfully steered Llama, OLMo and EXAONE targets.
- Overhead: total parameters grow from about 32B to 35B and still fit on 2× 46GB GPUs. Throughput drops by about 25% on L40S (10.1 to 7.6 tokens/s), mainly because the prototype queries the models sequentially, and parallel logit computation could remove most of this cost.
- Code and limitation: code is released at github.com/yunx-z/think-logit. The DPO alignment is offline, so it cannot adapt to new error patterns after deployment.
