Lightweight LLM Agent Memory with Small Language Models

Paper · 2026 · Jiaquan Zhang, Chaoning Zhang, Shuxu Chen et al.

Summary

LLM agents need persistent memory to stay consistent across long, multi-turn interactions. Existing approaches force a choice: similarity-search memory is fast but its accuracy varies, while memory managed through repeated large-model calls is more accurate but adds latency at every turn. LightMem addresses this by giving the frequent, structured online memory tasks to small language models (SLMs) and moving heavy consolidation to an offline stage.

Memory is organized into three tiers:

  • STM: the context window.
  • MTM: per-user episodic summaries tagged with user identifiers.
  • LTM: a de-identified, graph-structured knowledge base distilled offline by a large-context model.

Three SLMs handle the online work. A Controller plans hypothetical queries and the retrieval budget, a Selector re-ranks retrieved candidates for semantic consistency, and a Writer updates MTM after each turn.

On LoCoMo and DialSim, the system improves results across model scales while keeping latency and prompt size low. This makes it attractive for deployments where compute is limited.

Key points

  • Two-stage retrieval under a fixed Top-K budget:
    • Metadata-filtered vector search first collects 2K candidates, split evenly across the hypothetical queries.
    • The Selector (SLM-2) then keeps the most relevant half.
  • Accuracy and cost:
    • Average F1 gain of about 2.5 on LoCoMo.
    • Median retrieval latency of 83 ms (P95,167 ms) and median end-to-end latency of 581 ms with GPT-4o-mini.
    • Effective context of about 1K tokens, compared with roughly 16K for MemGPT.
  • Robustness as memory grows (DialSim, Llama-3.2-1B): LightMem's advantage over plain vector retrieval rises from 0.03 F1 at about 100 MTM entries to 0.29 F1 at 10,000 entries.
  • Error injection on DialSim:
    • Removing SLM-2 re-ranking or corrupting half of the writes lowers F1 from 4.12 to 3.83 and 3.78 respectively.
    • Combining all perturbations collapses F1 to 1.85.
  • Update-gap test (LoCoMo multi-hop): querying MTM and LTM together reaches 28.85 F1, compared with 19.45 for LTM only and 20.12 for MTM only.
