Right Question is Already Half the Answer: Fully Unsupervised LLM Reasoning Incentivization
Paper · 2025 · Qingyang Zhang, Haitao Wu, Changqing Zhang et al.
Summary
Standard pipelines for training reasoning LLMs depend on costly supervision such as annotated reasoning traces, verified reference answers or a separately trained reward model. This paper asks whether reasoning can be improved using only unlabeled questions. The authors propose Entropy Minimized Policy Optimization (EMPO), a GRPO-style reinforcement learning method that replaces external rewards with an intrinsic signal. For each question, the policy samples several responses. These are grouped into clusters of equivalent meaning, and the model is rewarded for lowering semantic entropy, so it learns to favour answers that agree with each other. An entropy threshold drops unreliable cases to keep training stable. With no labels at all, EMPO performs comparably to supervised RL on mathematical and free-form natural reasoning tasks. A pass@k analysis suggests the gains come from selecting reasoning paths already learned in pre-training more efficiently, not from acquiring new skills. The approach is a cheap, scalable option for domains where curated training data is scarce.
Key points
- Without supervision, EMPO raises Qwen2.5-Math-7B Base from 30.7% to 48.1% average accuracy on math benchmarks. It also raises Qwen2.5-7B Base from 32.1% to 50.1% on MMLU-Pro.
- The reward is semantic entropy computed over meaning clusters, where two outputs share a cluster if each entails the other. According to the authors, accuracy tends to be markedly higher when semantic entropy is lower.
- Training dynamics were tracked on 20K unlabeled prompts sampled from NuminaMath-CoT. Semantic entropy fell steadily while training accuracy rose.
- Unlike the concurrent TTRL, EMPO never trains on test prompts. It also extends beyond math to free-form question answering.
- On Minerva Math and OMNI, pass@k curves show that both EMPO and GRPO beat the base model at small k. At large k, the base model catches up or overtakes them.
