RAG-Star: Enhancing Deliberative Reasoning with Retrieval Augmented Verification and Refinement
Paper · 2025 · Jinhao Jiang, Jiayi Chen, Junyi Li et al.
Summary
Large language models often fail on multi-hop questions that require chaining several facts. Tree-search methods such as MCTS help with deliberative reasoning but rely only on the model's internal knowledge. Standard RAG feeds documents straight into generation, which can cause conflicts between retrieved and memorized knowledge.
RAG-Star addresses this by separating the two roles:
- Planning: the LLM uses Monte Carlo Tree Search to plan a sequence of sub-queries and answers from its own knowledge.
- Verification: retrieval checks and corrects those steps instead of steering generation directly. A query-aware reward scores how plausible each sub-query is, and an answer-aware reward scores how well the answer agrees with retrieved documents. Answers can be refined before rewards are backpropagated through the tree.
The approach was tested with Llama-3.1-8B-Instruct and GPT-4o on open-domain multi-hop QA benchmarks, including 2WikiMultihopQA. It beat earlier RAG and reasoning baselines. This suggests that using external evidence as feedback, rather than as direct input, is an effective way to combine search-based reasoning with retrieval. Code and data are public.
Key points
- Average improvements over baselines reach 18.98% with Llama-3.1-8B and 16.19% with GPT-4o.
- Each search iteration has four stages: node selection by UCT score, expansion into new sub-query/answer nodes, retrieval-augmented reward scoring, and backpropagation.
- On 50 sampled 2WikiMultihopQA questions, accuracy (CEM) rose from 32% at 10 simulations to 42% at 80. The best baseline (CoT) reached 34%. Retrieval took over half of total inference time, and gains level off as simulations grow.
- Llama-3.1-8B-Instruct was fine-tuned as the reward model with 20K–80K training examples, as an alternative to GPT-4o-mini. Verification quality improved with more data, then saturated.
