Planning with Multi-Constraints via Collaborative Language Agents
Paper · 2025 · Cong Zhang, Xin Deik Goh, Dexun Li et al.
Summary
LLM agents often fail at realistic planning problems with many interacting requirements, such as budgets or transport preferences. These problems need long chains of varied tool calls. The authors present PMC (Planning with Multi-Constraints), a zero-shot plan-and-execute framework that turns single LLM agents into a cooperating team. A manager agent splits the request into a dependency graph of sub-tasks and assigns each to an executor agent, treating executors as composite tools. The manager also separates constraints into two kinds: local ones, which an executor can handle within its own sub-task, and global ones, which span several sub-tasks. Executors convert their sub-tasks into tool-call sequences, for example with ReAct. A supervisor agent updates dependent sub-tasks using earlier results, and a deliverer agent assembles the final answer. On TravelPlanner, PMC raises the average success rate from 2.92% for GPT-4 to 42.68%. It also beats GPT-4 with ReAct on API-Bank. The approach still helps when a small open model serves as the planner, which suggests that structured multi-agent coordination can matter more than model size.
Key points
- Agent roles: PMC uses four roles: manager (task-level planning), executors (step-level planning and execution), supervisor (sub-task refinement) and deliverer (final output). Code is available at github.com/zcaicaros/PMC.
- TravelPlanner: PMC reaches a 42.68% average success rate, compared with 2.92% for GPT-4. It beats GPT-4+ReAct+CoT on the pass rate for every individual constraint. GPT-3.5 gains less from PMC than GPT-4 does.
- API-Bank correctness: PMC scores about 85% Correctness, versus 71.48% for the reimplemented GPT-4 CoT baseline (the original paper reported 70%). The paper gives the gain as 13.64% in the abstract, 13.62% in the introduction and roughly 14% in the conclusion.
- API-Bank metrics: Correctness was redefined to count only unique correct API calls, and a new Completeness metric was added. PMC also improves Completeness (64.08% with GPT-4), ROUGE-L (about 0.41) and repeated tool calls (only seven).
- Small model and limitation: With LLaMA-3.1-8B as a one-shot planner and GPT-4 as executor, PMC still clearly outperforms the GPT-4 baselines (e.g., 70.61% Completeness on API-Bank). A remaining limitation is that executor prompts must still be written by hand.
