HybridKV: Hybrid KV Cache Compression for Efficient Multimodal Large Language Model Inference
Paper · 2026 · Bowen Zeng, Feiyang Ren, Jun Zhang et al.
Summary
Multimodal LLMs turn every image or video frame into hundreds or thousands of tokens. As a result, the key–value (KV) cache held in GPU memory during decoding grows quickly and slows inference. Earlier compression methods only decide how much cache each token, layer or head keeps, and they apply a single strategy everywhere.
The authors analyzed Qwen2.5-VL-7B on VATEX and found two kinds of attention heads:
- static heads keep returning to a small, fixed set of tokens;
- dynamic heads shift their focus as generation proceeds.
Which kind a head is can be predicted during prefill from how sparse the attention from prompt text to the context is. This role also changes from task to task.
HybridKV works in three steps. It labels heads using this signal. It then splits the budget top-down, first between head types and then among individual heads. Finally, it prunes static heads with text-guided selection and stores dynamic heads in chunks that are fetched on demand during decoding.
Across 11 image and video benchmarks, accuracy stays near or above the full cache while memory drops and decoding speeds up. This makes MLLM deployment cheaper.
Key points
- Tested on Qwen2.5-VL-7B over 11 multimodal benchmarks. KV memory falls by up to 7.9× and decoding runs 1.52× faster, with roughly unchanged quality.
- With only 10% of the KV cache kept, it beats SnapKV, LOOK-M, MadaKV and SparseMM on eight benchmarks.
- Head behavior was studied on VATEX by counting how often each token ranks in the top 5% of attention over 500 decoding steps.
- Tuned hyperparameters are a static/dynamic classification threshold θ = 0.9 and a budget share coefficient r = 0.75. At θ = 0.75, average accuracy drops by 1.8 points.
- Removing both head-level and head-type-level allocation lowers NextQA from 33.86 to 33.29. It also raises latency from 38.65 to 44.67 ms/token.
