STEM: Structure-Tracing Evidence Mining for Knowledge Graphs-Driven Retrieval-Augmented Generation

Paper · 2026 · Peng Yu, En Xu, Bin Chen et al.

Summary

The paper addresses knowledge-graph question answering where answers require several reasoning hops. Existing KG-RAG methods have three weaknesses. LLM-written plans often name relations that do not exist in the target graph. Step-by-step path search loses track of the overall structure and returns fragmented evidence. Calling the LLM at every hop is expensive.

STEM instead treats retrieval as matching a whole subgraph against a schema. First, a fine-tuned Schema-Grounded Decomposition Agent (SGDA) splits the question into atomic relational assertions linked by shared placeholders. A Symbol-Aligned Graph Builder (SAGB) then turns these assertions into triples that form a query schema graph. Next, a Triple-Dependent GNN (Triple-GNN) produces a Global Guidance Subgraph. During traversal, this subgraph adds global entity- and triple-level bias scores on top of local semantic similarity. The retrieved evidence graph is verbalized for an LLM to answer.

On the Freebase-based benchmarks WebQSP and CWQ, the authors report state-of-the-art accuracy and more complete evidence. This suggests that grounding plans in KG structure matters for reliable multi-hop RAG.

Key points

  • Two-stage design:
    • Semantic-to-Structural Projection (SGDA + SAGB) maps the query onto KG-compatible triples and a schema graph.
    • Structure-Tracing Subgraph Retrieval, guided by the Triple-GNN's Guidance Graph, collects the evidence.
  • Pattern learning: SGDA is trained to learn general question-to-assertion patterns rather than memorize specific KG paths. This helps it avoid "schema hallucination," i.e., relations that sound plausible but are absent from the graph.
  • Evaluation: Experiments use WebQSP and CWQ over Freebase, with GPT-4o as the answering model. Planning baselines use Llama-3.1-70B-Ins and GPT-4o for decomposition.
  • Ablation: Removing the triple-level guidance bias hurts more than removing the entity-level bias.
  • Limitations and availability:
    • STEM needs fine-tuning and access to the target KG's schema, so it is not zero-shot.
    • The breadth strategy for multi-answer questions adds latency.
    • Code is released at github.com/PennyYu123/STEM_RAG.
