Agentic Memory: Learning Unified Long-Term and Short-Term Memory Management for Large Language Model Agents
Paper · 2026 · Yi Yu, Liuyi Yao, Yuexiang Xie et al.
Summary
LLM agents working on long, multi-step tasks are limited by finite context windows. Prior approaches handled the two memory types, long-term memory (LTM) and short-term memory (STM), in isolated components, governed by fixed rules, schedules, or an extra expert controller model. AgeMem (Agentic Memory) merges both memory types into the agent's own policy. Memory handling becomes a set of tool calls, and the model itself decides when to save, fetch, revise, condense, filter, or drop information.
Training follows a three-stage reinforcement learning curriculum built from HotpotQA trajectories:
- LTM storage first,
- then STM context control,
- then joint use on full tasks.
A step-wise variant of GRPO passes the final reward back to earlier memory decisions, which addresses sparse and fragmented reward signals.
Across five long-horizon benchmarks and several backbones, including Qwen2.5-7B-Instruct and Qwen3-4B-Instruct, AgeMem beats strong memory-augmented baselines. It improves task scores and stored-memory quality while keeping context usage efficient. The work suggests learned, end-to-end memory policies can replace handcrafted memory pipelines.
Key points
- Ablation (Qwen2.5-7B-Instruct, three datasets): the full system with LTM, STM, and RL gains +13.9%, +21.7%, and +16.1% over the baseline. LTM alone already adds +10.6%, +14.2%, and +7.4%. STM tools help most on SciWorld (+3.1%) and HotpotQA (+2.4%).
- Reward design (HotpotQA): the multi-component "All-Returns" reward beats a task-only reward. LLM-as-a-Judge rises from 0.509 to 0.544 and memory quality (MQ) from 0.479 to 0.533. Token use grows only slightly (2117 vs. 2078), and convergence is faster.
- FILTER threshold θ_f: results stay stable for values between 0.4 and 0.8. The best judge score, 0.551, comes at 0.5.
- Learned behaviour: after RL, retrieval becomes rarer and more query-driven, and this coincides with better accuracy and MQ.
- Limitations: the tool set is fixed, evaluation is limited to controlled settings, and training data comes only from HotpotQA.
