MAIN-RAG: Multi-Agent Filtering Retrieval-Augmented Generation
Paper · 2025 · Chia-Yuan Chang, Zhimeng Jiang, Vineeth Rakesh et al.
Summary
Retrieval-augmented generation can be undermined by retrieved passages that are off-topic or misleading. Such passages lower answer quality and add inference cost. MAIN-RAG is a post-retrieval filtering framework that needs no training or fine-tuning and runs on top of a standard retriever. It uses three LLM agents:
- Predictor: drafts an answer from each retrieved document separately.
- Judge: examines each Document–Query–Answer triplet and assigns a relevance score based on the log-probabilities of "Yes" versus "No".
- Final-Predictor: answers using only the retained documents, sorted from most to least relevant.
The cutoff, called the adaptive judge bar, is computed per query as the average of that query's relevance scores, so the threshold follows each query's score distribution. The framework was tested with Mistral 7B and Llama3 8B on four QA benchmarks, including TriviaQA, PopQA and ARC-C. It beat training-free RAG baselines by 2–11% in answer accuracy while passing fewer irrelevant documents to the generator. This makes it a practical plug-in alternative to training-based RAG.
Key points
- MAIN-RAG uses three agents (Predictor, Judge, Final-Predictor) and requires no labeled data or fine-tuning.
- The adaptive judge bar τ_q is the mean relevance score per query. Relevant documents tend to receive confidently high scores, while noisy documents are spread more evenly and reach much lower minimums.
- Answer accuracy improved by 2–11% over baseline RAG across four QA benchmarks, with fewer noisy documents kept.
- In ablations, descending order beat ascending order. For example, on PopQA with Mistral 7B, accuracy was 58.9 versus 53.5, consistent with LLMs favoring early context.
- Variants of τ_q shifted by multiples of σ sometimes scored higher, but the default τ_q was never worse than second-best on three benchmarks and both LLMs. Reported accuracies include TriviaQA 71.0 and 74.1, and ARC-C 58.9 and 61.9, for Mistral 7B and Llama3 8B respectively.
