AlphaResearch: Accelerating New Algorithm Discovery with Language Models
Paper · 2025 · Zhaojian Yu, Kaiyue Feng, Yilun Zhao et al.
Summary
The paper asks whether LLM agents can find genuinely new algorithms for open-ended problems that have no known optimum, without the large number of wasted, costly attempts typical of brute-force evolutionary search such as AlphaEvolve. The authors present AlphaResearch, an agent that cycles through proposing a research idea, turning it into code, executing the code and refining its proposals. Each candidate idea is first scored by AlphaResearch-RM-7B, a reward model trained on real peer-review records. Ideas below a threshold are discarded before execution, and the surviving ones are checked by a program-based verifier. The system is evaluated on AlphaResearch-Comp, a new set of eight open-ended algorithmic problems with best-known human results. AlphaResearch sets a new best-known value for packing 32 circles in a unit square and beats AlphaEvolve on two of the eight tasks. The work suggests that review-style feedback can make automated algorithm discovery more efficient and more effective.
Key points
- The system uses a dual environment. AlphaResearch-RM-7B, trained on peer-reviewed papers and their scores, filters ideas. An interpreter-based sandbox then measures how well each program actually performs.
- On "Packing Circles (n=32)", AlphaResearch reaches a sum of radii of 2.939, exceeding prior human and AlphaEvolve results. Against ShinkaEvolve, it converges faster to better programs on 3 of 4 problems.
- In an ablation over the first 400 iterations on circle packing, the reward model rejected 151 ideas. Of these, 108 were correct rejections of ideas whose execution would have failed, and 43 were wrongly discarded viable ideas, giving 71.5% accuracy.
- Across problems, roughly 30–40% of new ideas fall below the reward-model threshold. Execution success varies by task, from 28.9% on circle packing to 51.7% on the third autocorrelation inequality.
- Comparing backbones over 200 steps, GPT-5 makes progress faster than o4-mini early on. Both end at similar performance.
