Zeus: Understanding and Optimizing GPU Energy Consumption of DNN Training
Paper · 2022 · Jie You, Jae-Won Chung and Mosharaf Chowdhury
Summary
Training deep networks on GPUs uses a lot of energy. Yet most systems work tunes training only for speed. This paper shows that common speed-oriented choices, such as the largest batch size that fits in memory and the default maximum GPU power limit, often waste energy. It also shows that energy-to-accuracy (ETA) and time-to-accuracy (TTA) form a real tradeoff with a non-linear Pareto frontier.
The authors swept batch sizes and power limits for vision, NLP, recommendation and speech workloads on NVIDIA GPUs. They then built Zeus, a plug-in framework integrated with PyTorch, which is aimed at recurring training jobs. Zeus tunes two settings:
- Batch size: tuned across job recurrences, treated as a Multi-Armed Bandit solved with Thompson Sampling.
- GPU power limit: chosen by a just-in-time profiler while the job is running.
No offline profiling is needed. Compared with using the maximum batch size and power limit, Zeus cuts energy by 15.3%–75.8%, adapts to data drift, and extends to multi-GPU settings. The work matters because it treats energy as a primary resource in DNN optimization.
Key points
- Joint tuning beats tuning one knob. On a V100, tuning only batch size saved 3.4%–65.0% energy and tuning only power limit saved 3.0%–31.5%. Tuning both saved 23.8%–74.7%.
- Metric definition. ETA equals TTA multiplied by average power draw. Average power is not the same as the configured power limit, so a longer run can still use less energy.
- Hardware findings. None of four NVIDIA GPU generations was fully power-proportional, and running at maximum power gave diminishing returns. The V100 power limit range is 100W–250W, and power was measured via NVML.
- Workloads. These included DeepSpeech2 on LibriSpeech, BERT (QA and SA), ResNet-50, ShuffleNet V2 and NeuMF. Against the max-batch/max-power baseline, Zeus also reported up to a 60.6% reduction in training time.
- Context and code. GPUs account for roughly 70% of training energy. Training GPT-3 is estimated at 1,287 MWh. The code is at github.com/SymbioticLab/Zeus.
Interesting ideas
- I1. Use recurring jobs as an exploration budget. Periodic retraining on fresh data lets each run serve as one bandit trial. This could fit any pipeline that retrains regularly, such as NLP models refreshed on new corpora.
- I2. Bandits for noisy configuration evaluation. The same setting gives different results across runs because of random initialization and data order. Thompson Sampling deals with this naturally instead of trusting a single measurement. This is useful for any hyperparameter choice whose outcome varies by seed.
- I3. Split a joint search into two cheaper searches. Power limit can be profiled quickly within a run, while batch size needs whole runs to evaluate. Separating the two shrinks the search space without losing optimality. Looking for knobs that can be measured on short time scales is a general way to reduce expensive tuning.
- I4. Factor cost to move learned results across hardware. The cost splits into epochs needed, which depends only on batch size, and per-epoch cost, which depends on the GPU. Observations from one GPU can therefore be reused on another after briefly re-profiling only the per-epoch part. This helps on mixed or rented hardware.
- I5. Evaluate with an end-to-end target rather than throughput. Measuring energy until the target validation accuracy is reached, instead of samples per second, avoids rewarding settings that run fast but converge poorly. This is a good evaluation habit for any efficiency study.
