Disentangling Language and Culture for Evaluating Multilingual Large Language Models
Paper · 2025 · Jiahao Ying, Wei Tang, Yiran Zhao et al.
Summary
Multilingual LLM evaluation usually relies on one of two approaches. The first translates English-centric benchmarks, such as MMLU into MMMLU, which keeps the content anchored in Anglophone culture. The second uses native, culture-specific sets such as M3Exam and BLEnD, which tie each language to its own culture. Neither approach separates the language of a question from the culture it asks about. The authors propose a Dual Evaluation Framework that varies these two axes independently. They extend BLEnD's everyday short-answer questions so that the same template appears in native, cross-lingual and cross-cultural combinations. They then test eight open and proprietary models.
Two patterns emerge:
- Models are strongest on US-context questions, regardless of the question's language.
- Models answer questions about a culture better in that culture's language than in English. The authors call this "Cultural-Linguistic Synergy."
Neuron probing links this effect to a larger share of language-specific neurons activating in matched language–culture settings. The authors suggest this share could serve as a signal of multilingual ability during training. The work challenges the assumption that English-heavy models perform evenly across languages.
Key points
- Benchmark design: The benchmark has 9,500 items covering 7 languages: English, Chinese, Spanish, Indonesian, Korean, Persian and Sundanese.
- Each language is paired with one culture (US, CN, ES, ID, KR, IR and West Java).
- Each language–country pair has 500 items.
- Cross-cultural pairs were built only where English is one side.
- Non-English translations were generated with GPT-4o and checked by human evaluators.
- Models evaluated: GPT-4o, Claude-3.5-Sonnet, CommandR, Llama-3-8B/70B-Instruction, Gemma-2-9B, Qwen2.5-7B-Instruct and Bloomz-7B.
- Neuron count and performance: The total number of activated Key Neurons strongly tracks performance within a language, with a Pearson r of 0.95 for English questions. US-context questions activate the most neurons.
- Validating Key Neurons: Thresholds were chosen by masking neurons and checking two things:
- performance drops on the target task;
- performance on ARC, used as an out-of-distribution control, stays largely unaffected.
- Limitations: Probing was run only on Qwen2.5-7B-Instruct and Llama-3-8B-Instruction. Each language is represented by a single culture.
