Translation with Thought: Difficulty-Adaptive Reasoning via Reinforcement Learning for Multi-Domain Machine Translation

Paper · 2026 · Yongshi Ye, Biao Fu, Chongxuan Huang et al.

Summary

Multi-domain machine translation (MDMT) involves inputs whose difficulty varies widely. Standard LLM translators skip explicit reasoning. Large reasoning models such as DeepSeek-R1 reason at length on every sentence, even trivial ones. The authors propose TwT (Translation with Thought), which learns to spend reasoning effort only where it is needed, much as human translators slow down at "Rich Points" such as ambiguous terms or cultural gaps.

Training has two phases:

  • Cold start (SFT): DeepSeek-R1 produces long chain-of-thought traces. GPT-4o judges each input's difficulty and rewrites the trace to a matching depth.
  • Reinforcement learning: a hybrid reward combines BLEU, COMET and a repetition penalty.

Preliminary experiments motivate this design. Pure RL collapses into templated, shallow reasoning, while uniform CoT wastes tokens.

TwT was tested on 15 in-domain and out-of-domain benchmarks, covering 3 seen and 59 unseen languages, with three backbones. TwT-7B and TwT-14B beat much larger reasoning models on translation quality and use 32–60% fewer tokens. This suggests that difficulty-adaptive reasoning improves both the efficiency and the robustness of translation.

Key points

  • Collapse under pure RL: without cold start, roughly 73% of Zh→En reasoning traces fall into just three templates. Mean pairwise cosine similarity of traces is 0.89 for pure RL versus 0.51 for TwT, measured with multilingual Sentence-BERT.
  • Strong overall results: on in-domain data, TwT-Qwen2.5-14B-Instruct reaches an average quality of 65.49 with about 295 tokens. DeepSeek-R1 scores 64.09 with about 538 tokens, and OpenAI-o1 scores 64.63 with about 437 tokens.
  • Gains over General-CoT: on Easy inputs, TwT cuts tokens by 33% and raises quality by +6.4 points. On Hard inputs, quality rises by +6.7 points.
  • Less redundancy: TwT removes over 94% of the redundant reasoning steps found in the SFT-with-RL baseline, including 97.2% of low-density long descriptions.
  • Limitations:
    • RL data is not balanced by difficulty.
    • Distilled traces may inherit biases from the teacher models.
    • The reward has no length or difficulty shaping.
