Feedback-Driven Tool-Use Improvements in Large Language Models via Automated Build Environments
Paper · 2026 · Junjie Ye, Changhao Jiang, Zhengyin Du et al.
Summary
Training LLMs to call tools with reinforcement learning is difficult for two reasons. Online APIs make training environments unstable and costly to maintain, and judging trajectories usually requires a strong LLM as evaluator, which brings bias. The authors propose FTRL, which removes both problems. An automated pipeline of five stages (breaking scenarios into parts, writing tool documentation, merging functions together, raising task difficulty, and deploying locally) produces tool-use environments in which every tool executes locally as code. Each environment is tied to a known set of sub-questions, so the feedback is controlled and measurable. On top of this, a verifiable reward uses only environment feedback to score two things: how precisely tools are invoked and how completely the task is solved. Trajectories collected in these environments are then used with standard preference-based RL algorithms. Across Qwen models of several sizes, the method raises tool-use scores on four benchmarks while keeping general abilities intact. Parameter analysis links the gains mainly to changes in lower-layer MLP weights. The result is a cheap, reproducible route to tool-use RL without external services.
Key points
- Environments cover four scenario types: single-hop, parallel single-hop, multi-hop and parallel multi-hop. The training set has 2,215 instances averaging about 9.4 tools each, and the in-house test set has 200 instances.
- Evaluation spans the authors' test set plus ToolHop, τ-bench and RoTBench. Models include Qwen2.5-7B/14B and Qwen3-8B/14B, some in reasoning mode, trained with Reinforce++ and GRPO.
- An ablation compares the proposed reward against three alternatives:
- precision-only, which leaves tasks unfinished;
- completion-only, which encourages tool overuse;
- a plain product of the two, which trains unstably because its rewards are discrete.
- Training runs for three epochs with fresh trajectory resampling each epoch, and the largest jump comes after the first epoch. Scores on six general-purpose test sets do not degrade.
- Reasoning modes help on multi-hop scenarios but hurt single-hop ones, which the authors note as a limitation. Code and data are released at github.com/bytedance/FTRL.
