VecInfer: Efficient LLM Inference with Low-Bit KV Cache via Outlier-Suppressed Vector Quantization

Paper · 2026 · Dingyu Yao, Chenxu Yang, Zhengyang Tong et al.

Summary

During LLM inference, the KV cache grows with context length and takes up a large share of GPU memory. Vector quantization (VQ) can shrink it flexibly across bit-widths, but at very low bit-widths accuracy drops sharply. The authors trace this to outliers in the key cache, which sit far from the learned centroids and leave much of the codebook unused. VecInfer addresses this by applying channel-wise smoothing followed by a Hadamard rotation to the keys. Matching inverse operations on the queries keep attention scores mathematically unchanged. The transformed keys have a more uniform distribution, so a K-Means codebook trained offline covers them well and generalizes across tasks. For deployment, the authors wrote a CUDA kernel that performs dequantization inside the attention computation, using tiling and asynchronous pipelining. On long-context and math-reasoning benchmarks, VecInfer beats both scalar and vector quantization baselines from 1.25 to 4 bits. At 2 bits it nearly matches full precision while running much faster, which makes long-context LLMs more practical on memory-limited GPUs.

Key points

  • Baselines and models: VecInfer is compared with scalar methods (KIVI, ZipCache) and VQ methods (CQ, MILLION). Experiments cover Llama-3.1-8B-Instruct, Qwen2.5-14B-Instruct and Mistral-7B-Instruct-v0.3.
  • Speed (Llama-3.1-8B, 196k tokens, 2-bit KV cache):
    • large-batch self-attention is up to 2.7× faster on H100 and 2.8× faster on A100 than FP16;
    • single-batch end-to-end latency drops by 8.3× on H100.
  • Ablation on transformations: smoothing or Hadamard alone gives smaller gains than using both. The order in which the two are applied matters little.
  • Codebook size: larger codebooks raise accuracy but consume more shared memory. The chosen settings are 2^8 entries × 4 dims for 2-bit and 2^12 entries × 8 dims for 1.5-bit.
  • Code and limitations: code is on GitHub (ydyhello/VecInfer). Integration with vLLM or SGLang is left for future work.
