Beyond Chain-of-Thought, Effective Graph-of-Thought Reasoning in Language Models

Paper · 2023 · Yao Yao, Zuchao Li and Hai Zhao

Summary

Chain-of-Thought (CoT) prompting treats reasoning as a strictly linear sequence of steps, but human thinking often jumps between related ideas. The authors propose Graph-of-Thought (GoT), which pairs the usual text representation with a graph of "thought units" linked by edges. They build these graphs with an Extract-Clustering-Coreference (ECC) procedure. OpenIE extracts subject-verb-object triplets, and Stanford CoreNLP coreference resolution then merges nodes that mention the same entity. A graph attention network encodes the resulting graph. Its output is aligned with text (and optionally image) features through cross-attention and combined via a gated fusion layer. As in Multimodal-CoT, the system works in two stages: it first generates a rationale, then predicts the answer. The backbones are T5-based FLAN-Alpaca models in base and large sizes. Experiments on text-only AQUA-RAT and multimodal ScienceQA show consistent gains over CoT baselines, and GoT sets a new state of the art on ScienceQA despite having relatively few parameters. The main cost is extra computation and slower training compared with CoT.

Key points

  • On the ScienceQA test set with a T5-base model, GoT raises accuracy from 85.19% (Multimodal-CoT) to 87.59%. The authors report this beats ChatGPT by 9.28% and exceeds human performance.
  • Thought graphs come from the ECC pipeline: OpenIE triplets plus Stanford CoreNLP coreference clustering, stored as an adjacency matrix.
  • In ablations, GoT-base outperforms a Multimodal-CoT-base enlarged to the same 233M parameters by 2.04%. Replacing the real graph with a random one cuts accuracy by 4.47%, falling below Multimodal-CoT.
  • With a UnifiedQA+DETR setup, GoT improves over Multimodal-CoT by 3.54 points for base models (81.21 vs 77.67) and 1.37 for large models (82.74 vs 81.37).
  • The largest subject gain is in social science (+5.25%). Accuracy drops only 0.56 at higher grade levels, compared with 1.78 for Multimodal-CoT. Code is released at github.com/Zoeyyao27/Graph-of-Thought.
