Beyond Uniform SVD: Dual-Level Optimization across Columns and Modules for LLM Compression
Paper · 2026 · Lin Xv, Xian Gao, Ting Liu et al.
Summary
SVD-based compression of large language models usually factorizes each weight matrix as a single unit. It also sets per-module ranks through proxy heuristics. The authors of Duo-SVD argue that both habits cost accuracy. After truncation, most reconstruction error sits in a small set of columns, and that set stays stable across inputs. Modules also differ sharply in how much compression they can absorb.
Their training-free framework addresses each problem at its own level:
- Column-Preserving Strategy (CPS): keeps the most error-prone columns as a dense block and applies low-rank factorization only to the remainder. The number of kept columns is chosen by ternary search, because the error curve behaves unimodally.
- Module-Adaptive Allocation Strategy (MAAS): measures how much the model's output distribution shifts when each module is compressed at different ratios. It then solves a global constrained optimization that splits a fixed parameter budget across modules.
Tested on LLaMA and Mistral models, Duo-SVD outperforms earlier SVD-based methods and structured pruning on perplexity and downstream tasks. It also remains compatible with quantization. The trade-off is a heavier one-time offline profiling step.
Key points
- In the LLaMA-2 13B ablation against SVD-LLM, CPS alone lowers perplexity by about 10% and raises average accuracy by about 1.5 points. Adding MAAS brings roughly another 10% perplexity reduction and about 7 more accuracy points.
- Each compressed matrix runs along two paths: a dense path for the preserved columns and a low-rank bottleneck for the rest. The parameter cost is mc + r(m + n − c), so keeping more columns forces a lower rank r.
- The default calibration set is WikiText-2. Replacing it with C4 or Alpaca changes downstream average accuracy by less than 1%. WikiText-2 calibration improves WikiText-2 perplexity by 0.9 versus C4 calibration, but worsens C4 perplexity by 0.63.
- Cost on two RTX 3090 GPUs for LLaMA-2 13B: about 12.7 hours in total, of which MAAS profiling takes about 12 hours. SVD-LLM needs about 40 minutes.
- Stated limitations: no fused kernels or vLLM integration yet, so real speedups may lag behind theoretical ones. The convexity of the column-count objective is shown only for an approximate upper bound. Code is available at github.com/Pupu792/Duo-SVD.
