Benchmark Data Contamination of Large Language Models: A Survey

Paper · 2024 · Cheng Xu, Shuhao Guan, Derek Greene et al.

Summary

Large language models such as GPT-4, Claude-3 and Gemini are trained on web-scale corpora that may already contain the test sets later used to rank them. This survey, by researchers at University College Dublin, examines that problem, called Benchmark Data Contamination (BDC). When a model has seen benchmark material during pre-training or fine-tuning, its scores can reflect prior exposure rather than real ability. AI-generated content makes such leaks harder to trace. The authors define BDC formally, discuss its sources, and explain how it distorts benchmark, automatic and human evaluation. They show the risk across seven common NLP tasks. Existing work is then organised into a taxonomy of detection techniques and mitigation strategies, followed by open challenges. The contribution is conceptual rather than experimental: no new corpus or model is released. Its value is a structured overview for anyone choosing or designing LLM evaluations, including for less-resourced languages such as Ukrainian, where test sets often come from widely published sources.

Key points

  • BDC is graded into four levels: Semantic, Information, Data and Label. Severity grows as exposure approaches the full benchmark. Milder, indirect contamination is the harder kind to detect and remove.
  • The seven tasks discussed are code generation, machine translation, question answering, sentiment analysis, named entity recognition, fake news detection and text reconstruction. Examples include solution tutorials for code benchmarks, multilingual news reused in MT test sets, and COVID background knowledge skewing sentiment labels.
  • Detection splits into two families, matching-based and comparison-based. The methods listed include dataset inspection, membership inference, example generation, content comparison, sequential analysis and chronological analysis.
  • Mitigation is grouped into three strategies: curating new data, refactoring existing benchmarks (for example, regenerating them with LLMs) and benchmark-free evaluation.
  • Bibliographic details: arXiv:2406.04244v1, 6 June 2024, 31 pages, four authors (Xu, Guan, Greene, Kechadi).
