EfficientLLM: Unified Pruning-Aware Pretraining for Auto-Designed Compact Language Models

Paper · 2026 · Xingrun Xing, Zheng Liu, Shitao Xiao et al.

Summary

Small language models meant for phones and other edge devices are usually trained from scratch. Their quality is then limited by parameter scaling laws, while standard compression of a large model loses a lot of accuracy because pruning uses only a small calibration set. The authors present EfficientLLM, a framework that merges pruning, pretraining and architecture design into one training loop. A strong pretrained source model is pruned step by step on a large pretraining corpus. Three kinds of minimal parameter groups (attention heads, FFN channels, transformer stem channels) are scored by saliency, and the least important group is removed while weights continue to be optimized. Existing criteria such as LLM-Pruner, SparseGPT or Wanda can serve as the scoring method. Because the model's final shape comes from these saliency choices, its architecture is designed automatically instead of by hand. The resulting 134M, 457M and 1.1B models beat directly pretrained baselines, including MobileLLM, SmolLM, Qwen2.5-0.5B, OLMo-1B and Llama3.2-1B, on common-sense benchmarks while using far less compute. This narrows the gap between model compression and direct pretraining.

Key points

  • Average accuracy on 7 common-sense tasks:
    • EfficientLLM-457M scores 57.35 vs. 53.20 for Qwen2.5-0.5B, using 500B continued-pretraining tokens against Qwen's 17T.
    • EfficientLLM-1.1B scores 60.75 vs. 56.69 for Llama3.2-1B.
  • Training cost: EfficientLLM-457M needs 62× (50B tokens) or 16× (500B tokens) fewer GPU hours than Qwen2.5-0.5B.
  • Ablation (457M model):
    • The auto-designed architecture, unified pruning and longer pruning on 78B tokens together add 5.82 points over direct training.
    • Adding 50B tokens of continued pretraining raises the total gain to 7.53 points.
  • Instruction tuning: after fine-tuning on Alpaca (52K instructions, 3 epochs), EfficientLLM-1.1B wins against OLMo-1B, ShearedLlama-1.3B, TinyLlama-1.1B and Llama3.2-1B.
  • CPU deployment and quantization:
    • On 2 CPUs, EfficientLLM-457M runs ×3.2 faster than Qwen2.5-0.5B.
    • After 8W8A quantization with OmniQuant, accuracy barely changes (+0.09% for 457M, −0.27% for 1B).
    • Code is available on GitHub (Xingrun-Xing2/EfficientLLM).
