SFTMix: Elevating Language Model Instruction Tuning with Mixup Recipe

Paper · 2026 · Yuxin Xiao, Shujian Zhang, Marzyeh Ghassemi et al.

Summary

Instruction tuning usually trains LLMs with plain next-token prediction (NTP). Most efforts to improve it focus on building cleaner SFT datasets, which often means filtering with proprietary LLMs or paying human annotators. SFTMix improves the training recipe itself and works on uncurated data.

The authors observe that a model's confidence varies across regions of its semantic representation space:

  • Confident examples tend to be overfit.
  • Unconfident examples are hard to generalize from.

The method has three stages:

  1. A reference run measures each example's confidence from training dynamics.
  2. The dataset is split into confident and unconfident halves.
  3. Pairs drawn from the two halves are linearly interpolated, and a Mixup-based regularizer is added on top of the usual NTP loss.

Across the Llama, Mistral and Qwen families and several SFT corpora, SFTMix beats the NTP baseline on MT-Bench and AlpacaEval-2. It also improves medical question answering. Because the gains come without extra curation effort, SFTMix can be combined with existing data-selection pipelines.

Key points

  • Confidence is defined as the negative mean perplexity of an instruction-response pair, averaged over several training checkpoints. A t-SNE plot of the 2,500 most and 2,500 least confident Alpaca-52K examples (Llama-3.1-8B) shows the two groups clearly separated.
  • Instruction-following training sets were Alpaca-52K, UltraChat-200K and Tulu3-939K, with evaluation on MT-Bench and AlpacaEval-2.
  • In the healthcare setting, Llama-3.1-8B and Mistral-7B-v0.1 were tuned on MedAlpaca-263K. They gained about 1.5 points of absolute accuracy on average over four QA benchmarks.
  • SFTMix combines well with other techniques:
    • It works with data selection, using 1,000-example subsets chosen by AlpaGasus or by longest response ("Long").
    • It still beats NTP under LoRA fine-tuning.
  • Limitations:
    • SFTMix needs an extra fine-tuning pass to estimate confidence.
    • It was not tested on models above 14B or on pre-training.
