Spotlight and Shadow: Attention-Guided Dual-Anchor Introspective Decoding for MLLM Hallucination Mitigation
Paper · 2026 · Yebo Wu, Han Jin, Zhijiang Guo et al.
Summary
Multimodal LLMs often hallucinate, producing text that conflicts with the image. Training-free contrastive decoding methods such as VCD and ICD reduce this, but they need an extra forward pass for a perturbed "negative" input, and that perturbation can add noise of its own. This paper proposes Dual-Anchor Introspective Decoding (DAID), which takes its contrastive signal from the model's own intermediate layers. A layer-wise analysis of LLaVA-1.5 and LLaVA-NeXT on POPE found three patterns:
- Shallow layers hallucinate most.
- Intermediate layers recognize objects best.
- Deeper layers partly lose visual detail, which the authors call "seeing-then-forgetting."
For each generated token, DAID computes a Visual Attention Score, the attention mass a layer assigns to image tokens. The layer with the highest score becomes the "Spotlight," whose logits boost visual evidence. A low-attention shallow layer becomes the "Shadow," whose logits are subtracted to suppress language priors. All of this happens in a single forward pass. The authors report lower hallucination and better general reasoning across benchmarks such as POPE, CHAIR and MME, offering a cheaper, adaptive alternative to perturbation-based decoding.
Key points
- Cost of existing methods: VCD makes inference 1.83× slower than standard decoding on an NVIDIA V100. DAID needs no additional forward pass.
- Shallow-layer hallucination: On POPE, hallucination rates in shallow layers peak at 60.87% for LLaVA-1.5 and 44.44% for LLaVA-NeXT.
- Seeing-then-forgetting:
- Object recognition peaks at layer 25 in LLaVA-1.5 and layer 17 in LLaVA-NeXT.
- It then falls in deeper layers, by 4.45% and 11.12% respectively.
- In LLaVA-1.5, attention to visual tokens also peaks at layer 25 and dips around layer 6.
- Case study: With layer 2 as Shadow and layer 25 as Spotlight, DAID raised the correct answer's probability from 15.4% to 39.6%.
- Limitations: Experiments cover only 7B-scale models and image-text tasks. Video and audio are left for future work.
